How to Choose an AI Inference Accelerator for an On-Premises Server

Choose an accelerator only after you define the model, precision, context length, concurrency, and latency or throughput target. Then verify that the model fits in usable memory, that the exact software stack supports the card, and that the complete server can supply its PCIe, power, cooling, topology, and networking requirements. Compare finalists with matched workload tests and a full system quote; peak compute figures alone cannot identify the right or least-expensive option.

Start with a workload specification, not a product list

An inference accelerator is suitable only in relation to a particular service. Record these values before looking at hardware:

As an Amazon Associate I earn from qualifying purchases.

  • Model: architecture, parameter count, mixture-of-experts behavior, and exact model version.
  • Precision: FP32, FP16, BF16, INT8, INT4, or another quantization format, including whether weights, activations, and the key-value (KV) cache use different formats.
  • Context length: maximum input tokens and the typical context actually served.
  • Concurrency: simultaneous requests, batch size, and whether requests arrive continuously or in bursts.
  • Service objective: time to first token, token-generation latency, requests per second, tokens per second, or a combination.
  • Workload type: interactive user-facing responses, offline batch processing, embeddings, computer vision, speech, or mixed inference.
  • Availability target: acceptable downtime, failover design, and whether one server or several nodes are required.

Interactive language-model serving usually prioritizes predictable tail latency and enough memory for concurrent KV caches. Batch jobs can trade latency for larger batches and higher sustained throughput. A card that looks excellent in a batch benchmark may be a poor fit for an interactive API.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Turn the target into measurable acceptance criteria

Write a pass/fail statement such as: “At 8-bit quantization and a 16,000-token maximum context, serve 16 concurrent requests with time to first token below 500 milliseconds and at least 80 generated tokens per second at the 95th percentile.” The numbers must come from your application, not a vendor headline. If you need both latency and throughput, specify both; optimizing one can worsen the other.

Calculate memory capacity before comparing compute

Memory is a capacity constraint and a performance resource. The model must fit alongside the runtime, temporary workspaces, activations, and KV cache. A card that cannot hold the complete working set will require offload or sharding, often changing latency and software requirements.

Estimate weight memory

A first estimate is:

weight memory ≈ parameter count × bytes per parameter

Typical byte counts are 4 for FP32, 2 for FP16 or BF16, 1 for INT8, and 0.5 for INT4 before metadata and packing overhead. Quantized formats add scales, zero points, and alignment, so the result is not an exact allocation. Leave headroom rather than sizing to the arithmetic minimum.

Account for runtime and KV-cache overhead

Serving frameworks reserve memory for activations, temporary kernels, communication buffers, CUDA graphs or equivalent execution structures, and allocator fragmentation. Autoregressive language models also retain a KV cache for every active sequence. Cache demand grows with context length, layer count, hidden dimensions, cache precision, and concurrent sequences. A model that fits for one short request can run out of memory when several long conversations are active.

Ask the framework or model provider for a memory breakdown at your intended context and concurrency. Test the longest supported prompt, not only an average prompt. If memory is marginal, options include lower-precision weights, a lower-precision KV cache where supported, shorter context, lower concurrency, tensor or pipeline parallelism, or host-memory offload. Each option changes speed, quality, complexity, or software support.

Compare memory bandwidth separately from capacity

Large models repeatedly move weights and cache data. Memory bandwidth can therefore limit token generation even when compute units are underused. Do not treat different vendors’ peak bandwidth or TOPS figures as equivalent benchmarks: they may use different precisions, sparsity assumptions, clocks, and test conditions. Use the published numbers to understand architecture, then measure the exact serving stack.

Verify software support as a gating requirement

Hardware is not viable if your model cannot run reliably on its supported software path. Build a compatibility matrix for each candidate covering:

  • Exact model architecture and version.
  • Serving framework and inference server.
  • Compiler, runtime, and accelerator libraries.
  • Driver version and operating-system distribution.
  • Quantization method and conversion tools.
  • Required operators, custom kernels, and attention implementation.
  • Container image, Python or system-library versions, and security-update policy.

Request written confirmation for unsupported or recently released models. “Supports PyTorch” does not prove that a particular model, quantization format, or optimized attention kernel works. Confirm whether support is production-ready, experimental, or dependent on a nightly build.

NVIDIA software path

NVIDIA’s configuration guidance covers GPU inference servers, and its product documentation describes deployments from edge locations to data centers. The guide notes that each location has different environmental and compliance requirements and recommends targeting the higher end of system recommendations for large language models. Treat that as platform guidance, not a guarantee for a particular model.

AMD ROCm path

AMD describes Instinct accelerators around the ROCm software stack for training, inference, simulation, and mixed workloads. Validate the model, libraries, and kernels against the current ROCm release you will operate. Confirm that your serving framework, quantization converter, monitoring tools, and container base image are supported together, rather than checking the GPU name alone.

Intel Gaudi path

Intel’s Gaudi software material documents versioned containers for particular accelerator and operating-system combinations and names PyTorch and DeepSpeed among supported software. Gaudi 3 systems are offered through OEMs including Dell, HPE, and Supermicro. Intel’s inference results are tied to the stated hardware, software, and benchmark setup; reproduce that setup or explain every deviation before using the result for planning.

Make the server part of the accelerator decision

A card is only one component of an inference server. Obtain the exact server model and configuration, then check the following items with the system vendor or integrator.

PCIe slots, lanes, and topology

  • Confirm the physical slot width, generation, lane count, and bifurcation behavior.
  • Match PCIe speed and lanes to the accelerator specification; a mechanically compatible slot can still be electrically underspecified.
  • Balance devices across CPU sockets and root ports. NVIDIA’s configuration guide specifically calls for balanced placement to avoid a congested path.
  • Check whether a slot shares bandwidth with storage, networking, or another accelerator.

NUMA placement matters when host memory or CPUs feed the accelerator. Pin application processes and memory to the appropriate socket where your runtime supports it, then measure the effect rather than assuming the topology is harmless.

Power delivery and cooling

Use the card’s sustained board power, not only a short-term typical value, when sizing power supplies, cables, and UPS capacity. Account for CPU, memory, drives, fans, network adapters, and conversion losses. Verify connector type and cable routing.

Cooling depends on the exact chassis, fan curve, inlet temperature, and card airflow direction. A data-center passive card may require a server-specific duct and high-pressure fans; it is not automatically suitable for a workstation enclosure. Check clearance, adjacent-slot blockage, intake restrictions, and the maximum supported ambient temperature. The same GPU can have different limits in different server designs.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Host memory and storage

Host RAM holds model files, staging buffers, operating-system services, and offloaded layers. Large multi-GPU platforms can require very large host-memory configurations. For example, NVIDIA’s 8-GPU HGX configurations list at least two CPU sockets and at least 1.5 TB of system memory, along with balanced PCIe topology. Those are configuration-specific requirements, not a rule for every accelerator server.

Provide local storage for the model, tokenizer, container layers, logs, and checkpoints. If models are loaded on demand, measure startup time and storage throughput; a technically fast accelerator can still produce poor operational behavior when loading takes minutes.

Interconnect and networking

Multi-GPU systems may use a high-speed internal fabric, PCIe peer-to-peer transfers, or both. Confirm which communication path your serving framework uses for tensor or pipeline parallelism. Multi-node inference adds network latency, synchronization traffic, switch capacity, and failure modes. NVIDIA’s reference guidance cites at least 200 Gbps for multi-node inference; treat that as NVIDIA-specific guidance rather than a universal requirement. The correct speed depends on model partitioning, batch size, traffic pattern, and latency target.

Use published platforms as examples, not automatic recommendations

NVIDIA H200 SXM 141 GB HBM3e and 4.8 TB/s bandwidth per GPU in the same reference. The larger memory pool can change which models fit without partitioning. Actual serving performance still depends on software, context, concurrency, and system topology.
NVIDIA B200 SXM 180 GB HBM3e and up to 8 TB/s bandwidth per GPU in NVIDIA’s HGX reference. Represents a newer, very high-bandwidth platform. Validate availability, power, cooling, and supported server designs before planning around it.

Intel Gaudi 3 systems Available through OEM systems; Intel publishes model-specific inference results with stated software and hardware configurations. Use the published setup to judge applicability. Do not transfer a result to a different host, precision, container, or concurrency without testing.

The NVIDIA HGX reference describes 4-GPU and 8-GPU configurations and lists large language models and traditional deep-learning inference among target workloads. These platform specifications do not identify a universal best accelerator.

Benchmark finalists under identical conditions

Once memory and software screening leaves two or more viable configurations, run an apples-to-apples test. Keep every material variable constant:

  • Same model files, tokenizer, revision, and prompt set.
  • Same precision, quantization, and KV-cache format.
  • Same maximum and typical context lengths.
  • Same batch size, concurrency levels, and request arrival pattern.
  • Same generated response length or stopping criteria.
  • Same serving framework, runtime, container, driver, and operating-system versions.
  • Same measurement definitions, warm-up period, duration, and percentile calculations.

Measure the metrics users experience

  • Time to first token: responsiveness after a request arrives.
  • Inter-token latency: smoothness of streaming output.
  • End-to-end latency: includes queueing, prefill, generation, and network overhead.
  • Throughput: requests per second and generated tokens per second at each concurrency.
  • Tail latency: p95 and p99 values, not just averages.
  • Memory usage: peak allocation during the longest context and highest concurrency.
  • Reliability: errors, out-of-memory events, thermal throttling, and recovery behavior.
  • Power: accelerator and whole-server draw during representative load.

Run enough repetitions to expose cache effects and thermal behavior. Record clocks, temperatures, fan speeds, and throttling events. A vendor benchmark page is useful for understanding what was tested and how; it is not direct evidence of your result on another configuration.

Compare the complete cost, not the accelerator line item

No comparable current cross-vendor price data establishes a universal cost leader. Build a quote for the complete deployment:

  • Accelerator modules and any required bridge or interconnect.
  • Qualified server chassis, CPUs, system memory, storage, and power supplies.
  • Network adapters, cables, switches, and rack equipment.
  • Operating-system, runtime, management, and support subscriptions.
  • Shipping, installation, spare parts, warranty, and replacement coverage.
  • Electricity, cooling, rack space, and any power-distribution upgrades.
  • Engineering time for model conversion, testing, monitoring, and updates.

Calculate cost per useful unit, such as cost per million generated tokens at the required latency and availability. Include idle power and utilization: a high-throughput server that is mostly idle may cost more than a smaller system with adequate burst capacity. For a multi-node design, include switch ports, optics or cables, and the operational cost of managing additional hosts.

Choose between one large system and several smaller systems

Prefer one larger system when

  • The model or KV cache cannot fit on one accelerator.
  • High-bandwidth intra-node communication is essential.
  • You need a single shared memory pool or tightly coupled parallelism.
  • Your team can operate the required power, cooling, and maintenance infrastructure.

Prefer multiple smaller systems when

  • Requests can be routed independently without cross-node model partitioning.
  • You need maintenance without taking the entire service offline.
  • Rack power or slot density prevents a large server deployment.
  • Capacity can scale incrementally and workload isolation has operational value.

Do not assume that adding cards increases performance linearly. Communication, synchronization, memory contention, and scheduler overhead can reduce the gain. Benchmark the intended parallelism mode and failure behavior.

A practical selection procedure

  1. Freeze the workload definition. Write model version, precision, context, concurrency, latency, throughput, availability, and workload type.
  2. Calculate a memory envelope. Include weights, KV cache at maximum context and concurrency, runtime buffers, and safety headroom.
  3. Filter by software. Confirm the exact model, quantization path, framework, runtime, driver, operating system, and container.
  4. Filter by server compatibility. Obtain a supported chassis configuration and verify slots, lanes, topology, host memory, power, cooling, clearance, and networking.
  5. Select at least two viable configurations. Keep vendor and product comparisons separate from measured workload results.
  6. Request matched benchmarks. Require identical model, precision, context, concurrency, software versions, and response-length targets.
  7. Test failure and sustained operation. Include thermal soak, long-running service, restart, model reload, and one-device or one-node failure where relevant.
  8. Obtain a complete written quote. Include hardware, software, support, networking, facilities work, and operating costs.
  9. Document the decision. Record why the selected configuration passes memory, software, performance, reliability, and budget gates, plus which assumptions must be rechecked before purchase.

Common selection mistakes and fixes

Choosing by TOPS or peak bandwidth alone

Problem: Peak figures may use a precision or sparsity mode your model does not use and are not matched tests.

Fix: Compare measured latency, throughput, memory use, and power on the exact serving stack.

Ignoring KV-cache growth

Problem: A single-request test passes while production concurrency causes out-of-memory failures.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Fix: Test the maximum context and simultaneous sequences, then reserve headroom for runtime allocation.

Assuming a physical fit is a supported fit

Problem: The card fits the slot but lacks adequate lanes, airflow, power connectors, or firmware support.

Fix: Use the server vendor’s validated configuration and confirm every electrical and thermal requirement in writing.

Transferring a vendor benchmark to another system

Problem: Different model revisions, drivers, containers, batch sizes, or response lengths invalidate the comparison.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Fix: Treat published results as methodology examples and reproduce their conditions before drawing conclusions.

Budgeting only the accelerator

Problem: Networking, power distribution, cooling, support, and software later dominate the project cost.

Fix: require a complete bill of materials and facilities review before approving the accelerator.

What to ask a vendor or integrator

  • Is this exact accelerator, firmware, and driver combination supported in the proposed chassis?
  • Which slot, root port, CPU socket, and NUMA node should each device use?
  • What sustained board power, inlet temperature, airflow, and acoustic or fan conditions are assumed?
  • Which model architectures, quantization formats, and attention kernels are validated?
  • What memory remains after loading the model and running the stated context and concurrency?
  • Can you provide p50, p95, and p99 latency plus throughput at the requested concurrency?
  • Which software versions and container digest produced the benchmark?
  • What happens if one accelerator, host, network link, or node fails?
  • What are lead time, warranty, replacement procedure, and support escalation terms?
  • What are whole-server power and cooling requirements under sustained inference?

Bottom-line decision rule

Select the least complex configuration that passes all five gates: model memory at production context and concurrency, supported software, validated server and facilities fit, matched performance targets, and a complete cost and support plan. If a candidate fails any gate, a higher peak specification does not rescue it. Product generations, software support, and availability change, so recheck vendor documentation and obtain current written validation before ordering.
