There is no universally best forecasting method for nonlinear time series. The reliable way to choose one is to identify what is nonlinear, define the forecast you actually need, keep strong simple baselines, and compare appropriate candidates with leakage-safe, time-ordered backtests. Select the model that delivers the right error and uncertainty at your real forecast horizon and remains practical to operate—not the model that is newest or fits history most closely.
What “nonlinear” means in a forecasting problem
“Nonlinear” is not a model category. It can describe several different situations:
As an Amazon Associate I earn from qualifying purchases.
- Nonlinear dynamics: the effect of the current state changes as the system moves through different ranges.
- Regime changes: the process behaves differently during normal, peak, recession, outage, or other states.
- Nonlinear feature effects: temperature, price, promotion, or another input has a curved rather than proportional relationship with the target.
- Interactions: the effect of one variable depends on another, such as weather having a different impact on demand during a holiday.
- Nonlinear trend or transformation: growth compounds, saturates, or is better represented on a logarithmic or other transformed scale.
An apparent nonlinear pattern can also be caused by data errors, changing measurement rules, missing variables, or a structural break. Before selecting a model, determine which of these explanations is plausible and whether the future drivers will be available when a forecast is made.
System-identification documentation from MathWorks distinguishes nonlinear ARX and nonlinear grey-box models from linear and state-space approaches. Those methods are most useful when you know something about the system, its inputs, or governing equations; they are not automatic upgrades for every series.

Start with a precise forecast contract
Write down the forecast contract before looking at model scores. It prevents a model from winning an artificial contest that does not match deployment.
- Target: exactly what is being predicted, including units, aggregation, and any transformation.
- Timestamp and frequency: for example, hourly load, daily orders, or monthly revenue. Record the time zone and how late-arriving observations are handled.
- Forecast origin: the latest time at which data and features are known.
- Horizon: the number of steps or calendar period that decisions require. A one-step forecast and a 30-day forecast are different tasks.
- Update schedule: how often forecasts are regenerated and whether the training window expands or rolls.
- Permitted inputs: lags, calendar fields, prices, weather, planned events, and other covariates. Mark which inputs are genuinely known in the future and which must themselves be forecast.
- Decision and loss: what happens when the forecast is too high or too low. Inventory, staffing, capacity, cash planning, and safety decisions penalize errors differently.
This contract also determines whether a model can be global (trained across many series), local (one model per series), direct for each horizon, recursive, or probabilistic.
Diagnose the data before shortlisting models
Inspect level, trend, and seasonality
Plot the original series, differences, rolling averages, and seasonal profiles. Check whether a trend is persistent or merely a temporary episode. If there is one regular seasonal cycle, seasonal-naïve, ETS (exponential smoothing), Holt-Winters, and seasonal ARIMA are sensible starting points. With several cycles—such as hour-of-day and day-of-week—separate or jointly model the components. Microsoft Fabric documentation describes MSTL as a decomposition of trend, multiple seasonal components, and remainder; it still requires enough history for each cycle and validation across changing seasons.

1Scan for outdated or missing drivers - takes under a minute2Repair Windows errors before they cause bigger problems3Fix the driver behind crashes, sound loss and screen glitchesMeasure sparsity and zeros
Count zero observations, the distribution of nonzero sizes, and the gaps between nonzero events. A series with frequent zeros is not simply a low-volume version of a smooth series. For intermittent demand, evaluate occurrence and size separately when that reflects the decision. AWS describes its nonparametric time-series (NPTS) approach as a candidate for sparse or intermittent series; treat that as platform-specific suitability guidance, not a universal ranking.
Look for regimes, breaks, and interventions
Mark promotions, policy changes, outages, launches, competitor events, and sensor replacements. Compare relationships and variance before and after each event. A rolling-window, adaptive, feature-based, or regime-aware model may be appropriate, but no method can reliably infer an unobserved future break from the series alone. Randomly shuffling observations hides this risk and creates leakage.
Check missingness and future covariates
Document whether missing values are random, scheduled, or caused by the process being forecast. Identify which future inputs are fixed by a plan and which are unknown. A model that depends on a weather forecast, price plan, or promotion calendar must be tested with the same quality of inputs it will receive in production.

Assess the amount of usable information
For one series, the number of timestamps is not the same as the number of independent examples. For a global model, related series can increase the effective sample size, provided they share meaningful structure and are scaled and labeled correctly. Check cold-start behavior for new series and whether all series have the same frequency, horizon, and covariates.

Keep honest baselines
Every nonlinear candidate should be compared with simple forecasts. Include:
- Last-value naïve: the next value equals the latest observed value.
- Seasonal-naïve: the forecast repeats the value from the previous comparable season, such as the same hour last week.
- Drift or trend baseline: a simple extrapolation when a persistent trend is credible.
- ETS or Holt-Winters: a compact benchmark for level, trend, and seasonality.
- ARIMA or SARIMA: a statistical benchmark for autocorrelation, differencing, and seasonal structure.
Do not remove a baseline because it appears too simple. It exposes leakage, weak features, and overfitting, and it gives the business a defensible fallback when a complex pipeline fails.
The M4 competition evaluated 100,000 time series with 61 forecasting methods. Its results did not establish a permanent statistical-versus-machine-learning winner. The top three point-forecast entries used information from multiple series to select methods or forecast-combination weights, supporting careful comparison and combinations rather than a universal model choice. The competition also evaluated prediction intervals, not only point forecasts.
Match the method to the structure
| Observed need | Starting candidates | Checks before adoption |
|---|---|---|
| Stable level, trend, or one regular seasonal cycle | Naïve or seasonal-naïve, ETS/Holt-Winters, ARIMA/SARIMA | Does seasonality persist? Should trend be damped? Do baselines remain competitive at the required horizon? |
| Multiple seasonal cycles | MSTL or another multiple-seasonal decomposition; models that include calendar features | Is there enough history for every cycle, and do components remain stable across years or operating conditions? |
| Sparse or intermittent observations | Intermittent-demand methods, distributional baselines, NPTS | Score zero occurrence and nonzero size separately when useful; measure inventory or service-level loss. |
| Known dynamic system and meaningful inputs | Nonlinear ARX or nonlinear grey-box models | Are equations, inputs, and parameter interpretations available? Are parameters stable and extrapolation credible? |
| Many related series with useful covariates | Global tree-based, neural, or probabilistic models; compare with local baselines | Check scaling, shared patterns, future-feature availability, calibration, and cold-start performance. |
| Regime shifts or changing relationships | Regime-aware, feature-based, rolling-window, or adaptive models | Backtest across several historical regimes; test how quickly the model adapts after a break. |
| Long horizons or decisions that need uncertainty | Direct multi-horizon and probabilistic or quantile models; combinations | Measure each horizon, interval coverage and width, and recursive error accumulation. |
This table is a shortlist, not a ranking. AWS guidance about large collections, strong seasonality, and sparse data applies to its implementations. MathWorks guidance on nonlinear ARX and grey-box identification is aimed at system-identification workflows.
Understand the main nonlinear candidate families
Feature-based machine learning
Tree ensembles and other supervised learners can model nonlinear effects and interactions in lagged values, rolling statistics, calendar fields, prices, weather, and event indicators. They are attractive when you can construct reliable features and need a model that handles mixed inputs. Their risks are leakage in feature construction, unstable extrapolation beyond the training range, and a growing feature-maintenance burden. Test whether the same features will exist at every forecast origin.

Neural and global models
Neural models become more plausible when many related series provide shared training examples, covariates are informative, and you need a common model across entities. AWS documents CNN-QR and DeepAR+ as suitable for large collections of related time series. That is implementation guidance, not evidence that a neural model will beat a local baseline on your data. Check scaling, missing-series behavior, training stability, latency, and probabilistic calibration.
Nonlinear ARX and grey-box models
Nonlinear ARX models map past outputs and inputs through a nonlinear function. Nonlinear grey-box models encode known physical or business relationships while estimating unknown parameters. They can be interpretable and data-efficient when domain structure is real. They are a poor fit when the inputs are unavailable, the equations are speculative, or the system changes faster than parameters can adapt.
Regime-aware and adaptive approaches
Use state indicators, change-point features, rolling training windows, or separate models for distinct operating states when historical evidence supports them. Keep the state definition available at forecast time. A model that labels regimes using future information will look excellent in testing and fail in production.

Forecast combinations can reduce the risk that one model misses a changing pattern. Combine only candidates that add distinct information, and estimate weights inside each training window. Validate whether gains persist across series, horizons, and regimes rather than relying on one aggregate score.
Backtest in the order deployment will run
Microsoft Learn describes the procedure precisely: “A best practice procedure for evaluating a forecasting model is to roll the trained forecaster forward in time over the test set, averaging error metrics over several prediction windows.” Implement that principle as follows:
- Reserve a final future block when model selection is extensive. Do not use it to tune features, hyperparameters, or combination weights.
- Choose multiple forecast origins across the historical period. At each origin, train only on observations available before that time.
- Use expanding or rolling windows that match operations. An expanding window uses all prior data; a rolling window deliberately forgets older regimes.
- Generate the actual production horizon at every origin. If deployment needs 14 days, do not validate only one step ahead.
- Recreate the information set for every origin. Lag features must stop at the origin, and future covariates must be known plans or realistic forecasts.
- Store errors by horizon, series, subgroup, and regime, not only one overall average.
- Repeat with the same retraining frequency and preprocessing that production will use, including scaling, missing-value handling, and model refresh time.
Short test periods can make estimates noisy, especially when the test period is short relative to the forecast horizon. Report uncertainty around comparisons and avoid declaring a winner on a trivial score difference.

Choose metrics that reflect the decision
Point forecasts
MAE measures average absolute error and remains in the target’s units. RMSE weights large misses more heavily because errors are squared. Percentage metrics can be intuitive across scales but fail or become misleading when actual values are zero or near zero. Use a scale-aware alternative or a carefully defined weighted metric for zero-heavy data.
Set one primary metric from the business loss and report complementary metrics. For example, capacity planning may emphasize large under-forecasts, while replenishment may use a cost that distinguishes excess inventory from stockouts. Always report errors by horizon; a model can be excellent at one step and deteriorate rapidly at longer horizons.
Intervals and quantiles
If decisions depend on risk, evaluate prediction intervals or quantiles, not just a point estimate. Check empirical coverage—the share of actual outcomes inside the stated interval—and interval width. A very wide interval can achieve coverage while being useless; a narrow interval with poor coverage creates false confidence. M4 included prediction intervals in its evaluation, illustrating why uncertainty deserves a separate comparison axis.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Account for recursive forecasting and horizon strategy
A recursive model predicts one step, feeds that prediction back as an input, and repeats. Small errors can compound over a long horizon. Direct multi-horizon models predict each horizon separately and may reduce recursive accumulation at the cost of more models or parameters. A sequence-to-sequence or probabilistic model can produce a whole path, but still needs horizon-specific validation.
Compare strategies using the exact horizon and update schedule. If the business acts differently on day one and day 30, use horizon-weighted costs or separate service targets instead of hiding the difference in one average.
Compare practical operating cost, not just accuracy
Record these attributes for each finalist:
- Training time, inference latency, and hardware or compute requirements.
- Retraining frequency and the effort to rebuild features or recalibrate intervals.
- Interpretability requirements for operators, regulators, or customers.
- Robustness when an input is late, missing, out of range, or revised.
- Cold-start performance for new series and behavior when the number of series changes.
- Ease of rollback to a baseline and the monitoring needed to detect silent failure.
When accuracy differences are practically indistinguishable, prefer the candidate that is simpler to maintain and easier to diagnose. A small offline improvement is not worthwhile if it adds fragile dependencies or delays forecasts beyond the decision deadline.

Use a transparent selection record
For every candidate, preserve:
- the data window, features, transformations, and missing-value rules;
- the forecast origins, horizon, window type, and retraining schedule;
- primary and supporting metrics, including subgroup and horizon breakdowns;
- interval coverage and width when uncertainty is used;
- compute, latency, maintenance, and interpretability observations;
- the reason a model was accepted, rejected, or retained as a fallback.
This record makes it possible to distinguish a genuine model improvement from a favorable split, a leaked feature, or a temporary regime.
Monitor after deployment
Track realized errors as soon as outcomes arrive. Monitor error by horizon, series, segment, and regime; watch for changes in missingness, feature distributions, zero rates, and the number of active series. Compare the deployed model with its naïve or seasonal-naïve fallback continuously. Revisit the training window, features, model family, or forecast contract when the data-generating process or the business decision changes.
A stable monitoring plan should define alert thresholds, who investigates them, how forecasts are rolled back, and when retraining is triggered. Retraining on a schedule is not a substitute for checking whether the target, covariates, and loss still mean what they did during model selection.

Weekly retail demand with regular seasonality
Begin with seasonal-naïve, ETS, and SARIMA. Add promotion and calendar features only when they are known before the forecast origin. If a nonlinear model wins, require it to beat the seasonal baseline across several years and promotion regimes, not just on average.
Hourly load across thousands of sites
Benchmark each site locally, then test a global model using site identifiers, calendar variables, and available weather forecasts. Validate cold starts and missing weather inputs. Measure both point error and interval calibration because capacity decisions depend on tail risk.
Intermittent spare-parts demand
Separate the probability of a demand event from the quantity demanded when that matches the inventory decision. Compare intermittent-demand baselines and distributional candidates, and score stockout, holding, or service-level costs rather than relying solely on MAE over many zeros.
Quick Recap
Common selection mistakes
- Choosing a neural model because the data is labeled “nonlinear” without identifying the nonlinear mechanism.
- Randomly splitting timestamps, allowing future information into training or features.
- Optimizing one-step RMSE when the business needs a long-horizon quantile forecast.
- Using percentage error on a series containing zeros or near-zero actuals.
- Ignoring related series, covariate availability, or cold-start behavior when proposing a global model.
- Discarding simple baselines before proving a durable improvement.
- Declaring a winner from one short test window or one aggregate metric.
- Failing to budget for retraining, latency, missing inputs, and post-deployment monitoring.
