Raw confidence scores from a zero-shot model are not automatically trustworthy. To make them useful for decisions, define the event whose probability matters, fit a post-hoc calibrator on labeled examples that were not used to train the base model, and test the result on data resembling the population that will receive decisions. Temperature scaling is a strong multiclass baseline: divide every logit by a fitted scalar temperature, apply softmax, and choose the temperature that minimizes log loss on a held-out calibration set.
Then check reliability, discrimination, and decision outcomes separately. A calibrated top-label probability is different from a prediction set with a coverage guarantee or a classifier that can abstain. Those choices answer different operational questions, and none automatically guarantees equal performance for every class, language, or subgroup.

What calibrated confidence means
Calibration measures agreement between a model’s stated confidence and what happens in comparable cases. If all predictions assigned about 0.8 probability to the top label are correct roughly 80% of the time, confidence is well calibrated at that level. The statement concerns a group of predictions, not a guarantee about any individual answer.

Choose the event before choosing a method
Write down exactly what the number should mean:
- the probability that the top-ranked label is correct;
- the probability of one specified class;
- the probability that a token, span, or structured output is correct;
- the probability that an action will meet a business or safety criterion; or
- the probability used to decide whether to defer to a person.
These are different targets. A single top-label score does not automatically calibrate every class, sequence, or downstream outcome. For structured generation, confidence may need to describe several tokens or an entire output, so a multiclass calibrator may be inadequate.
Why zero-shot scores drift
Zero-shot describes how the base model is used, not whether its uncertainty is valid. The model may have learned broad patterns during pretraining, while the decision maker cares about a particular language, domain, label set, class prevalence, or output format. A calibration set still supplies task-specific supervision for the post-hoc mapping even when the base model was never fine-tuned on that task.
Transfer can change both accuracy and confidence. In a study of zero-shot cross-lingual predictions, Jiang, Liu, and Van Durme reported that models trained with source-language data became less calibrated in target languages; calibration error rose with intrinsic task difficulty and relative sparsity of training data. Their experiments found that temperature scaling generalized well to distant languages, while more complex structured confidence estimates sometimes benefited from expressive alternatives such as Gaussian Process Calibration. These are findings for the languages, tasks, and models they studied, not a universal ranking of methods. See the EMNLP 2022 study.

When the input mix changes, recalibration and fresh evaluation may be necessary.
A leakage-safe calibration workflow
1. Define the deployment population
Describe who or what will receive predictions: language, geography, domain, class prevalence, label definitions, and output format. Include the same kinds of edge cases and ambiguous examples that will occur in production. If the deployment population is multilingual, measure reliability by language rather than assuming an aggregate result applies equally everywhere.
2. Keep calibration labels independent
Use labeled examples that were not used to train the base model. Training-set predictions can make a fitted calibrator too confident on new examples. In a zero-shot setting, independence still matters: the labels used to fit the mapping are task-specific supervision, even though they do not update the model’s internal parameters.

Split the available labeled data into at least a calibration portion and an evaluation portion. If you tune several methods or hyperparameters, reserve a further test split or use a clearly documented validation protocol so that the final reliability estimate is not reused for selection.

3. Start with temperature scaling
For a multiclass model that returns logits z, temperature scaling computes:
probabilities = softmax(z / T)
The scalar temperature T is fitted on the held-out calibration set by minimizing log loss. A value above 1 makes the distribution less peaked; a value below 1 makes it sharper. Because every logit is divided by the same positive number, the maximum-logit class does not change. The method therefore addresses overconfidence or underconfidence while preserving the model’s ranking and label choice.
Temperature scaling is attractive when the main defect is the sharpness of probabilities and the calibration set is not large enough to support a highly flexible mapping. Guo, Pleiss, Sun, and Weinberger found it surprisingly effective on most of the image and document classification datasets in their 2017 experiments; that result should be read as evidence about those experiments, not as a guarantee for every zero-shot system. Their paper is available from PMLR.
4. Consider alternatives only when validation supports them
Scikit-learn documents sigmoid and isotonic calibration alongside reliability diagrams and scoring rules in its probability calibration guide. A sigmoid mapping is more flexible than one temperature but remains relatively constrained. Isotonic regression can represent non-monotonic shapes, yet it needs enough labeled examples to avoid fitting noise. For binary versus multiclass outputs, different class frequencies, and small calibration sets, select the method using held-out validation rather than complexity alone.
5. Evaluate on untouched, target-like data
Apply the fitted mapping once to an evaluation set that was not used to fit it. Report reliability and decision metrics together, and break them out for important classes, languages, or groups when sample sizes support meaningful estimates. If the deployment stream changes, monitor the same quantities over time and define a trigger for recalibration.

How to inspect reliability
Reliability diagrams
A reliability diagram bins predictions by confidence, then plots mean confidence against the empirical frequency of the event. Predictions near 0.8 should have an observed correctness rate near 0.8 in a well-calibrated bin. State the binning rule and show the number of examples in each bin: small bins produce noisy estimates, while very large bins can hide local problems.
Use the event you actually defined. A top-label diagram evaluates top-label correctness; it does not establish class-conditional calibration for every label. For a rare class, inspect one-vs-rest probabilities and report uncertainty around the estimate when counts are small. Aggregate plots can look acceptable while one language or subgroup is systematically overconfident.
Proper scoring rules, with their limits
Log loss and Brier score are strictly proper scoring rules: in expectation, a forecaster does best by reporting probabilities that match the true conditional distribution. They combine several properties, including calibration, discrimination or resolution, and outcome uncertainty. A lower score is therefore not proof that calibration alone improved.

Pair these scores with a reliability diagram or calibration-specific breakdown, plus an accuracy, ranking, or task-utility measure. For an operational threshold, also report the observed error rate above and below that threshold. Never use a single aggregate score as a substitute for examining the decision that the score controls.
Temperature scaling in practice
Inputs and fitting objective
Save the base model’s logits, the corresponding true labels, and an identifier for language, domain, or subgroup. Fit one scalar temperature by minimizing negative log likelihood on the independent calibration set. Do not refit the base model while fitting T; the point is to learn a post-hoc interpretation of fixed scores.
- Run the frozen zero-shot model on every calibration example and store logits in the original class order.
- Verify that labels, class names, and logit columns align exactly; a column-order error can produce apparently confident but meaningless probabilities.
- Optimize a positive scalar
Tagainst calibration-set log loss. - Apply
softmax(z/T)to a separate evaluation set. - Compare reliability diagrams, log loss, Brier score where appropriate, accuracy or ranking, and the downstream decision metric.
- Repeat the breakdown for languages, classes, and other groups that matter to the decision.
Record the calibration-set date, sampling scheme, class prevalence, language mix, fitted temperature, binning method, and evaluation results. These details determine what the probability means and make later drift checks possible.

What temperature scaling cannot do
- It does not change which class has the largest logit.
- It does not correct a label set that omits the true answer.
- It does not guarantee class-conditional or subgroup calibration.
- It does not make probabilities valid after a major domain, language, prevalence, or policy shift.
- It does not turn a sequence-level or structured-output problem into a calibrated single number.
When a prediction set is better than one probability
Sometimes the action needs a controlled chance that the correct label is included among several options, not a probability for one selected label. Split conformal prediction uses labeled calibration examples to choose a nonconformity-score threshold and returns a prediction set. Under its exchangeability assumptions, the familiar coverage statement is marginal: across the relevant population, the set contains the true label at the specified rate.
Marginal coverage is not automatically equal coverage for every class, language, or subgroup. If missing one class is more costly than missing another, define and test that requirement explicitly. Also measure set efficiency, such as the average or distribution of set sizes; a method can achieve coverage by returning unhelpfully large sets.
A CVPR 2025 study applied split conformal prediction to black-box zero-shot CLIP outputs across 15 datasets and three non-conformity scores. Those numbers describe the study’s scope, not a performance guarantee for other models or datasets. Read the details in Silva-Rodriguez et al.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. When abstention is the right decision layer
If a system can defer uncertain cases to a person or a second process, use selective prediction. Instead of asking only whether probabilities are calibrated, evaluate the coverage-risk curve: what fraction of examples does the model retain, and what error rate occurs among those retained cases? You can also report coverage versus accuracy for an operational threshold.
Abstention is not the same as a calibrated probability or a conformal set. A probability estimates an event; a conformal set controls an inclusion rate under stated assumptions; selective prediction chooses which cases to answer. A useful system may combine them, but each guarantee must be measured separately. Work on combining selective classification and conformal prediction, such as the UAI 2021 analysis by Ananthakrishnan and colleagues, is conditional on its stated assumptions; see the paper.

Comparing methods on the dimensions that matter
| Method or output | Primary question answered | What to measure | Important limitation |
|---|---|---|---|
| Temperature scaling | How should fixed multiclass logits be softened or sharpened? | Reliability, log loss, Brier score, accuracy or ranking | One scalar may be too simple for class-, language-, or structure-specific errors. |
| Sigmoid or isotonic calibration | Can a more flexible score-to-probability mapping fit the observed data? | Held-out reliability and proper scores, with calibration-set size and stability | Flexibility can overfit, especially with sparse labels. |
| Conformal prediction set | How often should the true label be included among returned options? | Coverage, class or subgroup breakdowns, and set size | Usual guarantees are marginal under exchangeability, not automatically conditional. |
| Selective classifier | How accurate is the system on cases it keeps when it may abstain? | Retained coverage, risk or accuracy, and the operating threshold | It does not by itself provide a probability or set-coverage guarantee. |
A 2025 ICML analysis cautions against assuming that temperature scaling always improves conformal behavior in every desired sense. In its study, adaptive conformal methods improved class-conditional coverage but also increased prediction-set sizes. Compare both coverage and efficiency rather than optimizing one calibration statistic. The analysis is available at PMLR.

Common failure modes and fixes
Using training predictions for calibration
Symptom: confidence looks excellent on familiar examples and collapses on new ones. Fix: fit the calibrator only on labels independent of base-model training, then evaluate on another untouched set.
Assuming zero-shot means no labels are needed
Symptom: raw scores are treated as probabilities without target-task checks. Fix: collect a small but representative labeled calibration set; zero-shot removes task fine-tuning, not the need to validate uncertainty.
Reporting only accuracy or one aggregate score
Symptom: a model is called calibrated because accuracy or log loss improved. Fix: add reliability diagrams, bin counts, proper scores, and decision metrics, then inspect material groups.
Overlooking prevalence and language shifts
Symptom: calibration degrades after launch even though the model and code are unchanged. Fix: compare deployment mix with the calibration sample, monitor drift, and recalibrate or re-evaluate when the target population changes.
Confusing marginal and subgroup guarantees
Symptom: an overall conformal coverage number masks poor coverage for a rare class or language. Fix: state whether the requirement is marginal, class-conditional, or subgroup-specific, and assess the corresponding counts and uncertainty.
Using a single number for structured output
Symptom: a token-level or top-label score is presented as confidence in an entire sequence or extracted structure. Fix: define the structured event and validate a confidence method designed for that object, or expose the limitation explicitly.
A deployment checklist
- Event: Is the score for top-label correctness, a class, a token, a structure, or a downstream outcome?
- Population: Do calibration examples match deployment language, domain, prevalence, and output form?
- Independence: Were calibration labels kept separate from base-model training and final evaluation?
- Baseline: Was temperature scaling tested before more expressive methods?
- Reliability: Are diagrams, bin counts, and class or subgroup checks reported?
- Decision: Does the application need a probability, a candidate set, or an abstention rule?
- Guarantee: Is the desired coverage marginal, class-conditional, or subgroup-specific?
- Efficiency: For sets or abstention, are set size and retained coverage reported alongside error?
- Monitoring: Are input mix, prevalence, reliability, and decision risk tracked after launch?
- Recovery: Is there a documented trigger to collect new labels, refit the calibrator, or route more cases to review?
Bottom line
Reliable zero-shot confidence is earned through target-specific validation, not inferred from a model’s raw scores. Define the probability first, use independent deployment-like labels, fit temperature scaling as a transparent baseline, and inspect reliability separately from discrimination and utility. Choose conformal sets when inclusion coverage is the goal and selective prediction when the system can abstain. State the population and guarantee precisely, because aggregate calibration does not promise equal reliability for every class, language, or subgroup.
