It is a controlled loop: the agent takes an action, the environment produces an observable result, an evaluator identifies what worked or failed, and an optimizer turns verified lessons into a prompt, memory entry, rule, policy, or model update. The loop becomes useful only when every change is tested against the same baseline tasks and reversible when it causes regressions.
The safest practical design starts with runtime reflection and versioned memory, adds targeted human corrections for knowledge changes, and treats model training as a separate, slower release process. Reflection can improve the current task without persisting; memory and rules persist across sessions but can become stale; training changes broad behavior and therefore needs the strongest data, evaluation, and approval controls.

What “self-improving” should mean
A useful agent has four parts: inputs and context, an agent system that selects actions, an environment that returns outcomes, and an optimizer that converts those outcomes into changes. This framing comes from the survey A Comprehensive Survey of Self-Evolving AI Agents. In an application, the environment might be a test runner, a database, a browser task, a support queue, or a human reviewer.

- [Deep Bass with Clear Vocals] High-performance drivers produce punchy bass while keeping vocals clean and detailed for everyday listening.
- Reflection: temporary reasoning before or after an action. It can catch a bad plan during the current episode but normally disappears when the context is discarded.
- Persistent memory or rules: a stored, scoped instruction or fact loaded in later sessions. It can prevent recurring mistakes without changing model weights.
- Model training: supervised fine-tuning or preference optimization that changes parameters. It needs curated examples, a training run, and a separate validation release.
None of these guarantees improvement. A confident but incorrect reflection can reinforce an error, a memory can outlive the fact it records, and training can spread a narrow preference to unrelated tasks. The design goal is measurable improvement on a defined task set, not the appearance of self-criticism.
Reference architecture for a learning loop
Build the system as an explicit state machine rather than hiding improvement inside one large prompt.
- Task intake: normalize the user request, permissions, constraints, and success criteria.
- State and context: provide the current environment state, the active subgoal, relevant history, and only the memories that are in scope.
- Planner and action policy: select from a bounded tool set and state why the next action should advance the subgoal.
- Environment: execute the action and return a machine-checkable result where possible.
- Evaluator: compare the result with the success condition; do not accept the agent’s own declaration as proof.
- Optimizer: create a temporary reflection, a candidate memory or rule, a revised plan, or a training example.
- Release gate: test proposed changes on fixed tasks, inspect safety effects, and promote only approved, versioned changes.
Keep episode notes separate from durable knowledge. A scratchpad can contain hypotheses and failed attempts; a persistent entry should contain only a verified lesson, its provenance, scope, timestamp, and a review or expiry condition.

1. Define an observable success signal
Write completion criteria before adding reflection. Prefer an external check such as a passing test, a validated state transition, an exact database value, or a required document field. For a browser task, “the order status equals shipped” is evaluable; “the agent says it finished” is not.
Record failure conditions too: unauthorized actions, invalid output format, exceeded retry budget, or a side effect outside the requested scope. If the environment cannot provide a perfect judge, combine deterministic checks with a human review sample and label uncertainty explicitly.
2. Make the action loop explicit
At every turn, supply the current state, subgoal, relevant history, and a bounded action list. Add three checkpoints:

- Anticipatory reflection: identify a plausible alternative action and the observation that would make the preferred action wrong.
- Post-action reflection: compare the new state with the subgoal immediately after the tool call.
- Episode reflection: after success or failure, identify the smallest plan change that would improve a future attempt.
These techniques were studied in the DEVIL’S ADVOCATE work in simulated WebArena tasks. The paper describes 812 tasks across five website scenarios; that is the environment’s task count, not a universal success rate or proof that the pattern works unchanged in every domain.

state = observe_environment()
for step in range(max_steps):
plan = agent.plan(state, subgoal, scoped_memory)
alternative, disconfirming_signal = agent.propose_alternative(plan)
action = policy.choose(plan, allowed_tools)
result = environment.execute(action)
check = evaluator.compare(result, subgoal)
log(step, state, plan, action, result, check)
if check.passed:
break
state = recover_or_update(result, check)
else:
mark_episode_failed()
Use a retry limit and a recovery path. If the same action fails twice, require a changed plan, a narrower tool call, or human intervention instead of allowing an unbounded loop.
3. Capture feedback as structured data
A free-form “try harder” comment is difficult to reuse. Store each feedback event with fields such as:
- task identifier, input, and relevant environment state;
- agent output or action, tool arguments, and policy version;
- observed result and evaluator decision;
- human correction, if any, including the reviewer role;
- the proposed lesson, its scope, confidence, timestamp, and evidence links;
- approval status, version, and rollback target.
Translate a correction into a testable rule. “The answer was wrong” becomes “when the account is marked suspended, do not call the payout tool; ask for reinstatement confirmation.” The latter can be checked automatically and reviewed for scope.
4. Promote only verified lessons to durable memory
Keep candidate lessons in a quarantine queue. Promote one when an environment check supports it, a qualified reviewer accepts it, or repeated independent episodes show the same constraint. Store the source event and an expiry or review date so a later operator can remove it.
For changing domain knowledge, timestamping matters. The ARIA paper describes updating an internal knowledge repository with human guidance, comparing new information with older entries, and asking clarification questions when facts conflict or become outdated (ARIA). Its authors report deployment at TikTok Pay serving more than 150 million monthly active users; that is an author-reported system scale, not independently verified telemetry or a guarantee for another deployment.

A practical memory record can look like this:
{
'rule': 'Use the regional tax table dated 2026-01-01 for invoices in region X',
'scope': 'invoice_calculation',
'source': 'review-1842',
'created_at': '2026-02-03T10:15:00Z',
'review_after': '2026-07-01',
'status': 'approved',
'supersedes': 'rule-77'
}
Resolve conflicts by scope and recency only when policy allows it; otherwise ask a human. Never silently merge contradictory instructions.
Choose what the loop updates
The update target determines persistence, observability, and risk. Select it deliberately rather than calling every change “training.”
| Update target | What changes | Persistence | Human labels | Rollback and risk |
|---|---|---|---|---|
| In-context reflection | Reasoning or plan for the current episode | Usually one episode | Optional evaluator signal | Easy to inspect; may repeat the same mistake later |
| Versioned memory or rule | Stored fact, constraint, or behavioral instruction | Later sessions within its scope | Recommended for promotion | Auditable and reversible; can conflict or become stale |
| Supervised model update | Parameters fitted to demonstrations | Broadly persistent after release | Demonstrations required | Needs training and regression testing; behavior is less transparent |
| Preference optimization | Parameters optimized from ranked outputs | Broadly persistent after release | Preference rankings required | Can generalize preferences unexpectedly; requires careful validation |
| Human-guided knowledge update | Timestamped domain knowledge and conflict decisions | Persistent repository entry | Expert correction required | Good for changing facts; depends on reviewer availability |
Reflection is the cheapest first step. Use rules when the lesson is crisp and auditable. Use training only when many high-quality examples show that a broad behavioral change is justified.
Design reflection prompts that produce actions
Ask for a diagnosis tied to evidence, not an essay. A useful reflection record contains the intended subgoal, the observed result, the failed assumption, a corrected next action, and whether the lesson is safe to persist.
System: You are the post-action evaluator. Use only the state and tool result supplied.
1. State the subgoal in one sentence.
2. Cite the exact observation that proves or disproves it.
3. Identify the failed assumption, if any.
4. Propose one recoverable next action and its expected result.
5. Give a candidate rule only if the lesson is supported by the observation.
6. Mark persistence as temporary, review_required, or approved_by_policy.
7. Flag permission, privacy, financial, medical, or other high-impact effects for human review.
Pass the evaluator the tool result and relevant state, not the agent’s hidden chain of thought. Keep a compact structured record for auditing. If the evaluator cannot distinguish success from failure, improve the environment check instead of adding more reflection text.
Turn human corrections into a controlled feedback pipeline
- Collect: store the original task, output, result, correction, and reviewer identity or role.
- Normalize: rewrite the correction as a rule, test, or labeled demonstration with a defined scope.
- Check conflicts: compare it with active memories, policy documents, and newer timestamps.
- Validate: run the new rule against representative successes, edge cases, and known failures.
- Approve and version: record the reviewer, change description, effective date, and rollback pointer.
- Monitor: measure recurrence and regressions after deployment.
For coding agents, one 2026 deployment report describes 18 behavioral rules, more than 15 language-specific standards, and a 15-item self-review checklist stored as version-controlled artifacts. The authors report zero recurrences across nine tracked error classes over 74 cumulative post-rule session exposures (Self-Improving AI Coding Agents Through Accumulated Behavioral Rules). This was an observational single-deployment result without a controlled baseline, so treat it as an implementation example rather than a statistical guarantee.

When model training is justified
Training is a separate path from runtime reflection. In Training language models to follow instructions with human feedback, the authors used demonstrations for supervised fine-tuning and ranked outputs as a later preference signal. Their human evaluations preferred a 1.3-billion-parameter InstructGPT model to a 175-billion-parameter GPT-3 model on that paper’s prompt distribution. The result does not mean smaller models are generally better; it shows that data and objective alignment can outweigh parameter count in a particular evaluation.
Prepare training data only after recurring failures are well characterized:
- Deduplicate near-identical episodes and remove secrets or unnecessary personal data.
- Keep the original task, desired response or action, and evaluator rationale.
- Separate training, validation, and held-out regression tasks by scenario, not just by random row.
- Include negative examples showing unsafe, out-of-scope, or subtly incorrect behavior.
- Compare the candidate model with the current model using identical tools, prompts, and budgets.
A model update should not be the first response to a single bad episode. A scoped rule or tool guard is easier to inspect and reverse while evidence accumulates.
Evaluate every proposed improvement against a baseline
Maintain a fixed evaluation set containing routine successes, boundary cases, known failures, and safety-sensitive tasks. Run the current agent and the candidate change on the same inputs and record:
- task success and evaluator confidence;
- regressions on tasks that previously passed;
- action count, retries, and time to completion;
- human interventions and review effort;
- latency and token or tool cost when those affect operations;
- policy violations, unauthorized side effects, and privacy incidents.
Use a promotion rule such as “no critical safety regression, no statistically meaningful drop on the core set, and a measured benefit on the target failure class.” The threshold must fit the domain; the cited studies provide task-specific measures, not one universal acceptance number.
Keep evaluation artifacts immutable: task version, agent version, memory snapshot, tool versions, and evaluator version. Otherwise a changing benchmark can make an apparent improvement impossible to reproduce.

Safety controls and common failure modes
Reflection becomes self-justification
Symptom: the agent writes a persuasive explanation after an incorrect action. Fix: require independent environment evidence, cap retries, and let the evaluator return “unknown” instead of forcing a pass or fail.
A mistaken lesson persists
Symptom: a one-off exception appears in unrelated sessions. Fix: quarantine candidate memories, attach scope and provenance, require approval for broad rules, and support instant rollback.
Knowledge goes stale
Symptom: the agent follows an outdated policy or price. Fix: timestamp entries, define review or expiry dates, compare new guidance with older records, and escalate conflicts to a qualified reviewer.

Symptom: identical tool calls consume the retry budget. Fix: detect repeated arguments, force an alternative or recovery branch, and stop after a bounded number of attempts.
Training spreads a narrow preference
Symptom: a model tuned for one workflow performs worse elsewhere. Fix: use held-out scenarios, retain the previous model for rollback, and require release approval based on regression results.
Autonomous updates create side effects
Symptom: a proposed rule changes permissions, financial actions, safety behavior, or other high-impact decisions. Fix: require human approval, least-privilege tools, dry runs, and an audit log before activation. The survey of self-evolving agents identifies safety and ethical considerations as central concerns, so these controls should be part of the architecture rather than an afterthought.
A practical deployment checklist
- Success and failure conditions are written before optimization begins.
- Environment checks, not self-reported completion, decide whether a task passed.
- Anticipatory, post-action, and episode-level reflection are bounded by step and retry limits.
- Temporary notes are isolated from approved persistent memory.
- Every durable entry has scope, provenance, timestamp, status, and rollback information.
- Human corrections become testable rules or labeled examples.
- Candidate changes run on a fixed baseline set with edge cases and known failures.
- Metrics include success, regressions, retries, interventions, and domain-specific cost.
- Permissions, external side effects, and high-impact decisions require review.
- Previous prompts, memories, policies, and models remain restorable.
How to choose a starting design
For a new agent, begin with deterministic evaluation, bounded reflection, and an append-only event log. Add a small, versioned rule store after you can show that a lesson is real and scoped. Introduce human-guided knowledge updates when facts change faster than model releases. Consider model training only after the same failure pattern appears across enough reviewed examples to justify a broad behavioral change.

This progression keeps the feedback loop understandable: observe an outcome, explain the discrepancy with evidence, propose one change, test it against the baseline, and release it behind a reversible gate. The agent may then improve over time, but each improvement remains attributable to a specific signal and change.
The Bottom Line
Build self-improvement as an evaluated control loop, not an unconstrained self-editing prompt: verify outcomes, reflect within the task, promote only supported lessons to versioned memory, train models only from curated feedback, and keep every change measurable and reversible.
