Build it by defining the deployment envelope, mapping variation across tasks, objects, scenes, sensors and robot dynamics, collecting grounded demonstrations, adding bounded simulation variation, and testing on conditions deliberately withheld from training. Episode count matters only after those coverage gaps are understood.
What “representative” means in robot learning
Representativeness is relative to a deployment, not a property that can be awarded to a dataset in isolation. A warehouse-picking policy, a household tidying policy and a bimanual assembly policy need different examples. The right dataset contains the combinations of instructions, objects, layouts, sensing conditions and robot behavior that the deployed system is expected to encounter, including difficult but consequential cases.

A large log can still be narrow. For example, thousands of demonstrations of one cup, one camera angle and one tabletop arrangement may teach a policy to replay that arrangement rather than to grasp cups generally. Conversely, a smaller collection that covers several object instances, placements, lighting conditions and successful recovery behaviors may support better generalization.
Think of the dataset as a coverage map. Each episode is evidence for particular values and combinations of factors. The central management question is not “How many episodes do we have?” but “Which deployment conditions are represented, and which are absent or untested?”

Start by defining the deployment envelope
Write down what the robot, task and operating environment will be before choosing a collection method. This document becomes the sampling plan and the boundary for deciding whether a synthetic variation is plausible.
Task and instruction variation
- State the task outcome in observable terms, such as placing an object in a bin, inserting a part or opening a drawer.
- Break the task into phases or skills: approach, grasp, transport, alignment, insertion, release and recovery, as applicable.
- List the instruction forms the policy will receive. Different wording can matter when language or high-level commands are part of the system.
- Record legitimate strategies separately from failures. Two operators may complete the same task with different trajectories; that is useful variation when both satisfy the task definition.
Objects and materials
Enumerate object families, instances and properties that can change in deployment. Include shape, size, color, texture, material, mass, friction, compliance and wear when those properties affect contact or perception. Distinguish a new instance of a familiar category from a genuinely new category; they test different forms of generalization.
Spatial and environmental variation
Describe object positions and orientations, reachability, clutter, fixtures, container geometry and background surfaces. Note which arrangements are common, which are rare but safety-critical, and which combinations are impossible. A scene generator should not sample configurations that violate the task or the robot’s workspace.
Sensing and appearance
Record camera viewpoints, pose, field of view, resolution and relative placement. Specify expected lighting, shadows, reflections, backgrounds and occlusions. Include sensing noise, missing observations and calibration variation only when those effects could occur on the target system.
Robot and control factors
Capture robot-specific details that influence behavior: joint limits, backlash, friction, damping, actuator latency, offsets, payload, controller settings and contact dynamics. A policy trained on idealized motion may fail when the real arm has delay or small calibration errors.
Turn the envelope into a coverage matrix
A coverage matrix makes omissions visible. Put task phases or skills in rows and important variation dimensions in columns. For every cell, record observed examples and combinations rather than a single total count.
| Coverage dimension | Examples to track | Useful holdout |
|---|---|---|
| Task phase | Approach, grasp, transport, insertion, release, recovery | Unseen combinations of familiar phases |
| Object | Category, instance, shape, material, mass, friction | New instances and unseen categories |
| Spatial layout | Position, orientation, clutter, fixture and container arrangement | New placements and layouts |
| Appearance | Color, texture, illumination, background, shadows and occlusion | New appearance combinations |
| Camera and sensors | Viewpoint, field of view, calibration, resolution and noise | Held-out poses or noise conditions |
| Robot dynamics | Mass, friction, damping, latency, offsets and payload | Target-hardware tests under changed conditions |
| Demonstrator or instruction | Operator, trajectory style, wording and speed | Unseen operator or instruction forms |
Mark whether each combination is observed, synthetically generated, invalid, or intentionally reserved for evaluation. Pay special attention to interactions: a camera angle that works for an empty table may fail when a tall object creates an occlusion, and a familiar object may behave differently when placed on a low-friction surface.

MESA’s evaluation framework is a useful model for separating ordinary in-distribution performance from tests with unseen spatial layouts, categories, instances and composite tasks. You can implement the same logic in a spreadsheet or dataset manifest even if you do not use that project.
Collect grounded demonstrations first
Real-robot demonstrations anchor the dataset in the target hardware, sensors and environment. Teleoperation is a common way to collect them because an operator can adapt to contact, uncertainty and small physical deviations that are difficult to model.
Design the demonstration protocol
- Define success and termination. Specify the observable condition that marks success, acceptable retries and safety stops. A trajectory should not be labeled successful merely because the controller ran to completion.
- Sample the planned coverage. Assign operators scenes and object instances that fill gaps in the matrix instead of allowing everyone to choose the easiest setup.
- Capture synchronized records. Store observations, actions, timestamps, robot state, camera calibration and task metadata together so trajectories can be replayed and audited.
- Record recoveries. If the deployed policy must handle a slip, occlusion or failed grasp, collect demonstrations that show a valid recovery rather than deleting every imperfect attempt.
- Review quality. Reject corrupted sensors, unsafe motion, ambiguous outcomes and trajectories that do not demonstrate the intended skill. Keep a reason code for every rejection.
Use operator diversity deliberately
Different people can add useful strategies, timing and viewpoints. However, variation in style must not be confused with inconsistent task definitions. Give operators the same success criteria, record operator identity as metadata, and audit whether one operator’s data has a systematically different error rate or control convention.
Teleoperate in simulation when useful
Simulation can also be teleoperated. This combines human demonstrations with controlled changes in object placement, appearance and scene composition. Label these episodes as simulated, retain the simulator version and parameter seed, and do not treat them as proof that the target robot will execute the behavior correctly.
Expand coverage with bounded simulation variation
Simulation is valuable for fast resets, parallel environments and procedural changes that would be slow or expensive to stage physically. Its purpose is to add plausible variation, not to maximize randomness.
Randomize variables that can change in deployment
- Appearance: object colors, textures, materials, illumination, shadows, backgrounds and camera pose or field of view.
- Physical properties: object mass and friction, surface friction, compliance and contact parameters within credible operating ranges.
- Robot properties: joint friction and damping, actuator latency, control offsets, payload and other hardware tolerances.
- Sensors: measurement noise, missing pixels, blur, timing jitter and calibration offsets when they reflect the real sensor.
- Scene structure: object positions, orientations, clutter and fixture arrangements that remain physically valid and task-relevant.
NVIDIA’s sim-to-real guidance emphasizes that there is no single list of parameters to randomize. Choose variables by asking what is likely to vary and what the policy might exploit. Ranges require judgment: overly narrow ranges leave gaps, while implausibly broad ranges can reduce performance on normal cases or encourage slow, overly cautious behavior.
Inspect generated episodes
Sample rendered scenes and trajectories before training at scale. Check for interpenetrating objects, unreachable goals, impossible grasps, incorrect labels, camera views that contain no useful information and dynamics that are outside the robot’s capabilities. Automated validity checks should be supplemented by visual review of representative and extreme samples.

Keep a sampling record
Store the random seed, simulator version, parameter values, scene generator version and success label for each episode. Without this provenance, you cannot reproduce a failure, determine which distribution produced an improvement or remove a problematic batch without discarding the entire dataset.

Preserve task validity while increasing diversity
Variation is useful only when the episode still represents the task. A randomized scene that makes the goal impossible is not a hard example; it is a mislabeled example.
- Reject scenes in which objects overlap unrealistically, goals are unreachable or required contacts violate the robot’s workspace.
- Verify that the action trajectory corresponds to the generated scene and that timestamps remain synchronized.
- Check that success labels reflect the task outcome, not merely a simulator termination flag.
- Separate valid difficulty from sensor or rendering corruption. Keep corrupted data only when the corruption models a real deployment failure.
- Track the proportion of valid episodes by generator configuration; a high rejection rate can reveal a flawed sampler.
How many demonstrations do you need?
No universal episode target is established for robot learning. The needed amount depends on task complexity, policy architecture, sensor richness, object and scene variation, demonstration quality and the degree of generalization required.
Use coverage and performance to decide when to collect more:
- Set minimum representation goals for each task phase and important condition.
- Reserve evaluation data before expanding the training set.
- Train a baseline and report results by condition, not only as one aggregate success rate.
- Inspect failures and identify whether they arise from absent coverage, poor labels, control limits or perception errors.
- Add targeted real or simulated examples for the diagnosed gap.
- Stop when additional data no longer improves the held-out conditions that matter to deployment, while continuing to monitor safety-critical cases.
Counts can hide duplication. Ten thousand near-identical trajectories may contribute less than a few carefully selected examples of an unseen object instance or an uncommon but consequential layout. Keep frequency information, but use it alongside a coverage audit.

Separate training coverage from generalization evaluation
Do not evaluate only on scenes drawn from the same distribution as training. Maintain a fixed test split that is inaccessible to data-generation decisions, and report each generalization axis separately.
In-distribution performance
Use familiar object categories, instances, layouts and sensing conditions to measure whether the policy learned the task at all. This is a necessary baseline, not evidence of broad robustness.

New spatial layouts
Hold out positions, orientations, clutter patterns or fixture arrangements. Keep object identities familiar so the test isolates spatial generalization.
New object instances
Use previously unseen examples from categories represented during training. This tests whether the policy learned category-level cues rather than memorized an object’s exact appearance.

Unseen categories
Test categories absent from training only when the task definition makes such transfer meaningful. A policy may reasonably fail if the new category changes the required manipulation strategy.
Composite tasks
Evaluate new combinations of familiar subtasks, such as grasping followed by insertion in a layout that was never demonstrated. MESA describes this type of compositional evaluation alongside spatial and semantic splits.
Target-robot evaluation
For a sim-to-real claim, run the held-out tests on the physical robot and environment that matter. Simulator-only success demonstrates simulator performance; it does not establish transfer to hardware.

| Axis | Simulation | Real robot |
|---|---|---|
| Variation | Procedural randomization can change many scene parameters quickly. | Requires changing actual objects, lighting or setup. |
| Collection speed | Fast resets and parallel environments can increase throughput. | Collection proceeds in real time and may require operator scheduling. |
| Physical fidelity | Dynamics, contacts and sensors are approximations. | Captures target hardware, wear, calibration and environmental effects. |
| Hardware wear | No physical wear during simulation. | Motors, grippers and fixtures accumulate use and may need maintenance. |
| Transfer evidence | Useful for training and controlled comparisons. | Necessary to establish performance on the target robot. |
A hybrid process usually offers the best balance: use real demonstrations to ground behavior, simulation to broaden controlled variation, and physical evaluation to test whether the added breadth transfers. Neither source is automatically superior for every task. Highly dynamic contact, deformable objects or unmodeled friction can make transfer especially difficult.

Clear out junk files and repair common Windows errorsFree Scan →Scan for outdated or missing drivers - takes under a minuteDriver Scan →What sim-to-real evidence does and does not show
Sim-to-real transfer is possible, but a successful result on one task is not a guarantee for another. An OpenAI publication from October 18, 2017, reported transfer of a simulated object-pushing policy to a real robot and robustness to calibration error. That result supports the feasibility of the approach in that experimental setting; it does not establish a universal randomization range or a guaranteed recipe for every robot.
Best Value
To make a defensible transfer claim, document the simulator, randomization ranges, training split, physical robot, calibration procedure and held-out test conditions. Report failures as well as successes, and avoid presenting simulator metrics as substitutes for measurements on the target hardware.
Diagnose failures with condition-level metrics
Aggregate success can improve while a critical subgroup gets worse. Maintain a dashboard that breaks results down by task phase, object category and instance, layout, camera condition, lighting, operator or instruction form, and robot state where relevant.
- Fails only on new instances: add instance and appearance diversity, then check for memorized visual cues.
- Fails on new layouts: expand spatial sampling and verify reachability and collision labels.
- Fails after contact: inspect mass, friction, compliance, latency and force or tactile sensing assumptions.
- Fails under camera changes: review viewpoint coverage, calibration metadata and sensor-noise modeling.
- Fails only in simulation: inspect validity and labeling; the generator may be creating artifacts.
- Fails only on hardware: compare real and simulated timing, dynamics, occlusion and calibration before adding more generic data.
Keep the evaluation split unchanged while adding corrective data. Otherwise, improvements may reflect leakage into the test set rather than better generalization.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Clear out junk files and repair common Windows errors3Fix the driver behind crashes, sound loss and screen glitchesSpecialized generators and benchmarks
Purpose-built infrastructure can reduce the cost of coverage management, but it should be treated as an example rather than a universal prescription. RoboTwin 2.0 documents a scalable bimanual data generator and benchmark with 50 bimanual tasks and a RoboTwin-OD dataset. Such a system can be useful when its task definitions, robot model and scene assumptions match your project; it does not remove the need to validate on your own deployment envelope.
Likewise, an evaluation framework such as MESA can provide a disciplined split between in-distribution, spatial, category, instance and composite-task tests. The important practice is the separation of training and evaluation conditions, regardless of which software generates them.
A practical dataset checklist
- Deployment robot, task outcome, sensors and operating environment are written down.
- Task phases and legitimate recovery behaviors have explicit labels.
- Object categories, instances, materials, masses and friction ranges are identified.
- Spatial layouts, clutter, fixtures, camera poses, lighting and backgrounds are mapped.
- Robot-specific latency, offsets, friction, damping, payload and sensor noise are considered.
- A coverage matrix records observed combinations, not only total episode count.
- Real demonstrations anchor the target hardware and include quality and safety checks.
- Simulation randomization uses plausible ranges and preserves task validity.
- Every generated episode has provenance: seed, parameters, software version and labels.
- Evaluation splits hold out layouts, instances, categories and composite tasks where relevant.
- Physical tests are used for claims about the physical robot.
- Failures are analyzed by condition and drive targeted rebalancing.
Bottom line
Build representative robot data as an iterative coverage-and-evaluation system. Define the conditions that matter, collect grounded demonstrations, add only plausible simulated variation, audit every example, and reserve genuinely unseen conditions for testing. When a policy fails, add data for the diagnosed gap rather than simply increasing the total episode count.
