Small AI models can be delivered to many IoT devices, trained locally with federated learning, or relayed between devices and gateways. Those are different operations, not one autonomous “replication” feature. A dependable system needs a compatible inference runtime, enough flash and RAM, a bandwidth-aware distribution path, signed and device-targeted packages, version and rollback controls, energy planning, and recovery for interrupted or failed updates. Current evidence demonstrates these building blocks, but not universal, autonomous propagation across heterogeneous IoT fleets.

What “replication” means for an IoT model

When people say an AI model could replicate across IoT devices, they may be describing three separate designs. The distinction determines what software, network traffic and security controls are required.

Central or gateway-managed deployment

A server, cloud service or local gateway sends a trained model package to selected devices. The device downloads the artifact, stores it, verifies it and loads it into an inference runtime. The OTA-TinyML method published by Sudharsan and colleagues retrieves model C source over HTTPS and supports fetching, storage and execution on constrained hardware. Its reported test scope covered six model types, four memory types and seven popular microcontroller boards. This is model distribution, not a device deciding on its own to copy a model to every neighbor.

Federated learning

In federated learning, each participant trains on local examples and sends an update—such as gradients or weight changes—to an aggregator. Raw sensor records can remain on the device, but update messages, coordination traffic and a compatible training protocol are still required. The aggregated model can then be distributed back to participants. Local training is much more demanding than running a finished inference model, so a device that can execute a tiny classifier may still be unable to train it.

Peer-assisted dissemination

Devices or gateways relay a complete model or an incremental update to other nodes. Relaying can reduce dependence on a distant server or help a disconnected site, but it adds peer discovery, authenticity, version consistency and battery costs. A July 2026 SSRN preprint evaluates partial, peer-assisted model-update dissemination over constrained IoT radios. Its results are preliminary and apply only to the studied encodings, transfer strategies and radio conditions.

One deployment can combine these patterns—for example, a gateway can distribute an inference model, while devices federate a later training round—but the trust boundaries and failure modes remain separate. Sending a trained package is deployment; exchanging updates to improve a model is collaborative training; forwarding a signed artifact is a distribution topology.

What a device must support before it can receive a model

Compatible execution software

The target needs an inference runtime and kernels for the model’s operators. Google’s LiteRT for Microcontrollers documentation, updated May 28, 2026, says its core runtime “just fits in 16 KB on an Arm Cortex M3 and can run many basic models.” The 16 KB figure is the runtime footprint in that documented configuration, not the size of every model or a universal minimum for an IoT product. The same documentation describes a limited operation set, no operating-system requirement and no dynamic allocation, and states that on-device training is unsupported.

Flash, RAM and persistent storage

Flash must hold the installed model and usually a second copy, temporary download data or a recovery image. RAM must hold input buffers, intermediate tensors and output data while inference runs. Quantization and pruning can reduce model storage and memory, but may change accuracy and require kernels that the target runtime supports. A package that fits in flash can still fail at runtime if activation memory exceeds available RAM.

Device identity and hardware targeting

A model package should identify the hardware class, runtime version, operator set, input shape and required memory. A package built for one microcontroller family may not execute on another even when both expose a similar network interface. The update service therefore needs an inventory of device capabilities and an explicit targeting rule instead of broadcasting every artifact to every node.

How an over-the-air model rollout works

A production rollout treats a model update much like firmware because it changes executable behavior. The following sequence separates preparation, transfer and activation.

  1. Build a target-specific artifact. Convert the trained model to the device’s supported representation, record its size and resource requirements, and bind it to a hardware and runtime compatibility range.
  2. Create a manifest. Include the model identifier, version or sequence number, target class, hash, size, dependencies, expiration or policy fields and the signing key identifier. Keep the manifest available before the payload so a device can reject an unsuitable update without spending energy on a full download.
  3. Sign the manifest and payload. Use a trust anchor provisioned on the device. Verification must cover the exact bytes that will be activated, not merely a filename or transport connection.
  4. Select a rollout cohort. Start with a small, representative group. Check inference health, resource use and connectivity before expanding to the rest of the fleet.
  5. Transfer with interruption tolerance. Low-bandwidth links need fragmentation and reassembly, flow control and resumable transfers. Store chunks safely and verify the complete hash before replacing the active model.
  6. Stage without destroying the known-good copy. Use an inactive partition, separate model slot or equivalent transactional mechanism. A device should continue using the previous version until the new one passes integrity and compatibility checks.
  7. Activate and test. Switch versions during an energy-aware window, run a self-test and record the result. If boot, allocation or inference checks fail, automatically return to the previous model or recovery image.
  8. Report status. Record which version is installed, whether verification and activation succeeded, and the reason for any failure. Gate the next rollout wave on these results.

RFC 9019, the IETF’s April 2021 architecture for constrained-device firmware updates, notes that low-end images may be several kilobytes and sometimes exceed 100 KB, while Linux-capable IoT devices may use images of several megabytes. Those figures describe firmware images, not model-only packages, but they illustrate why transfer resumption, fragmentation and storage planning matter.

Security: a model update is a remote-code boundary

Even if a file contains only model weights, the package can alter device behavior; a model bundled with new runtime code is plainly executable. RFC 9019 summarizes the risk: “An update is essentially authorized remote code execution, so any security problems in the update process expose that remote code execution system.”

  • [Dont Hesite to Order] 24 hours customer services and professional technology team are standing by
  • Authenticate the source. Verify a digital signature or an equivalent message-authentication mechanism against a device-held trust anchor. HTTPS protects a connection but does not replace artifact verification.
  • Authorize the target. Bind the manifest to the intended vendor or operator, hardware class and policy. Do not let a valid package for one product line install on another.
  • Prevent rollback attacks. Store a monotonic sequence number or version floor in protected storage and reject older, revoked images unless an authenticated recovery procedure explicitly permits them.
  • Verify before execution. The boot chain or model loader must check integrity and authenticity before activating the staged artifact.
  • Protect keys and logs. Keep signing keys off update servers where possible, rotate them through an authenticated process and retain tamper-resistant status records for investigations.

RFC 9019 calls a reliable and secure update mechanism necessary because vulnerabilities in IoT devices create a large attack surface. A fleet that can receive a model but cannot prove its origin has a distribution feature, not a safe replication system.

Bandwidth, radio use and failure recovery

For battery-powered devices, radio transmission and flash writes can consume a significant share of the energy budget. Schedule downloads when the device is awake, use a gateway or store-and-forward relay when direct links are unreliable, and avoid repeatedly transmitting bytes that a node already holds.

Whole models versus compact updates

Whole-model delivery is operationally simple and makes version reconstruction deterministic, but it moves the most bytes. Compression and quantization reduce traffic at the cost of decompression work or possible accuracy changes. Differential or selected-layer updates can be smaller, yet the device must possess the exact base version and apply the patch correctly. A failed or missing base can make a compact update unusable, so a periodic full-image checkpoint is prudent.

Interrupted transfers

Use chunk checksums, a final content hash, explicit offsets and resumable sessions. Persist enough transfer state to survive a reboot, but avoid wearing flash with a write for every tiny packet. A gateway can cache verified chunks and serve them again without forcing the cloud connection to restart.

Recovery paths

Keep a known-good model or recovery image and reserve enough storage to activate it. If verification, memory allocation or a post-update health check fails, mark the new version bad, restore the previous one and report the error. Recovery must work when the network is unavailable; otherwise a failed update can strand a remote device.

Federated learning: keeping raw data local does not remove the hard parts

Federated learning is attractive when sensor records are sensitive or expensive to move. Devices train on local data, transmit an update and receive an aggregated model. However, participation may be intermittent, processors may differ and local datasets may be highly unbalanced.

Zhao and co-authors reported in 2018 that highly skewed non-independent-and-identically-distributed data reduced accuracy by up to 55% in their tested neural-network settings. In their CIFAR-10 experiments, adding 5% globally shared data increased accuracy by about 30% under the studied strategy. These are experiment-specific results, not a fleet-wide guarantee. They demonstrate why a model that works on one device’s data can diverge when averaged with updates from very different devices.

Design decisions for a federated round

  • Define the minimum runtime and training capability; an inference-only microcontroller may need a gateway to train or aggregate.
  • Set participation rules for devices with limited battery, storage or connectivity.
  • Track the base model version for every update and reject updates produced from an obsolete base.
  • Measure quality by device group and geography, not only by one global score.
  • Decide whether a small shared dataset is acceptable. It can reduce divergence, but distributing representative examples introduces a privacy and centralization trade-off.

Federated learning can reduce raw-data centralization; it does not make communication free, guarantee privacy against every inference attack, or ensure that heterogeneous devices can train the same model.

Comparing four practical architectures

Architecture Where training occurs Bytes exchanged Raw data leaves device? Main strengths Main constraints
Central OTA Server, cloud or gateway Full model or firmware package Not required for deployment Simple version control and repeatable artifacts Central link and server capacity; requires secure staging and rollback
Gateway-assisted OTA Server or gateway Cached packages or chunks Not required for deployment Works better across intermittent local links; can save radio energy Gateway becomes a trust and availability dependency
Federated learning On participating devices, with aggregation elsewhere Gradients, weights or deltas Raw examples can remain local Uses local data without centralizing every record Non-IID data, coordination, training cost and update privacy risks
Peer-assisted dissemination Wherever the model was trained Full artifacts or incremental updates Not required for distribution Can reduce central-server load and reach disconnected nodes Peer authenticity, discovery, consistency and extra battery use; production evidence remains preliminary

None of these options is universally best. Choose according to model size, link reliability, battery budget, privacy requirements, hardware diversity and the consequences of a bad update.

A practical reference design for a mixed IoT fleet

  1. Inventory capabilities. Record processor, RAM, flash, runtime and current model version for every device class.
  2. Separate training from inference. Train centrally or on gateways unless a device has explicitly tested training support; deploy a compact inference artifact to constrained nodes.
  3. Use a signed manifest and staged slots. Require target matching, anti-rollback checks and a verified inactive copy before activation.
  4. Exploit gateways intelligently. Cache packages, resume interrupted transfers and schedule radio activity around battery and duty-cycle limits.
  5. Canary the release. Start with a small cohort, monitor memory failures, latency, sensor-quality changes and update success, then expand.
  6. Keep recovery independent. Retain a previous model or recovery image and make rollback possible without a live cloud session.
  7. For federated rounds, measure drift. Track update age, data distribution and accuracy by cohort; pause aggregation when a class of devices behaves unexpectedly.

What the current evidence does—and does not—show

OTA-TinyML demonstrates a way to fetch and execute models on constrained boards. LiteRT documentation establishes that a very small microcontroller runtime is possible, while also documenting operation and training limits. RFC 9019 provides the security, transfer and recovery architecture needed for dependable updates. Federated-learning experiments quantify how skewed data can damage accuracy. The 2026 peer-assisted preprint explores incremental dissemination under constrained-radio limits.

Together, these sources support feasibility of the components, not a claim that arbitrary IoT devices can autonomously copy models at scale. Heterogeneous runtimes, incompatible operators, limited memory, intermittent links, battery constraints, key management and recovery engineering remain decisive. Replication becomes practical only when the system treats model delivery as a controlled, observable update process and treats collaborative training as a separate protocol with its own quality and privacy safeguards.
