How Low-Bit Quantization Affects LLM Accuracy, Speed, and Memory Use

Low-bit quantization stores an LLM’s weights with fewer bits, usually cutting weight memory and sometimes improving inference speed. It does not guarantee a fixed reduction in total GPU memory, a universal speedup, or unchanged accuracy: activations, runtime overhead, the KV cache, kernels, hardware, model architecture, and workload all affect the result.

For a useful decision, compare a higher-precision baseline and the quantized model on the same application. Measure task quality, peak memory at real context lengths and batch sizes, time to first token, generation latency, throughput, and runtime compatibility rather than judging a model by its bit width alone.

What low-bit quantization changes in an LLM

Quantization reduces the numerical precision used to store model parameters. A model saved in FP16 uses 16 bits for each weight; an INT8 representation uses 8 bits, and an INT4 representation uses 4 bits. The immediate target is the weight tensors, so the model file and the memory needed to hold those weights can become much smaller.

Runtime memory is larger than the weight file. During inference, a server also needs memory for activations, temporary buffers, framework overhead, and the key-value (KV) cache used to avoid recomputing attention states for earlier tokens. The KV cache grows with context length and often with batch size. Weight-only quantization therefore may solve a model-loading problem without solving a long-context serving problem.

Weight quantization and KV-cache quantization are different interventions. Weight quantization changes the stored model parameters; KV-cache quantization compresses cached attention keys and values. A deployment can use one, the other, or both, but their memory effects should be measured separately.

How much GPU memory can quantization save?

As idealized weight-precision arithmetic, converting FP16 weights to INT8 halves the storage required for those weights, while converting FP16 to INT4 reduces it by 75%. Meta presents those figures in its Llama quantization guidance, but also warns that end-to-end memory savings can be smaller once non-weight allocations are included. Its recommendation is direct: “Because actual memory savings can be less than the computed savings, you should test for the actual memory usage on real hardware when comparing models.” See the Meta Llama quantization guide.

Conversion Idealized reduction in weight storage What the figure does not establish
FP16 to INT8 50% It is not a guaranteed 50% reduction in total GPU memory.
FP16 to INT4 75% It does not include activations, runtime buffers, framework overhead, or KV-cache memory.

A simple planning equation is weight memory ≈ parameter count × bits per weight ÷ 8. That arithmetic describes packed weights only. Metadata, scales, zero points, padding, unquantized layers, and the runtime’s workspace add overhead, so a weight-file estimate should not be treated as a capacity guarantee.

When a smaller model footprint changes the hardware requirement

Lower weight memory can let a model fit on fewer or smaller accelerators. Google Cloud’s GKE inference guidance gives deployment examples in which GPTQ-quantized Llama 2 13B and AWQ-quantized Gemma 7B can be served on one L4 GPU, while the corresponding unquantized examples used two L4 GPUs. Those are illustrative scenarios for the specific models and deployment configurations in that guide, not a universal rule for every 7B or 13B model. Read the Google Cloud GKE LLM inference guidance for the stated setup.

Fitting the weights is only the first capacity check. Reserve headroom for the longest context you will accept, the maximum concurrent requests, prompt-processing activations, and the serving framework’s temporary allocations. A configuration that loads successfully can still run out of memory when several long requests arrive.

Does 4-bit quantization make an LLM faster?

It can, but “4-bit” is not a speed specification. Quantization may reduce memory traffic and enable low-precision kernels, especially when inference is memory-bandwidth-bound. If the runtime lacks an efficient kernel for the selected format, dequantization overhead or unsupported operations can erase the benefit. Compute-bound workloads, unusual model layers, and different accelerator generations can produce different results.

Meta describes quantized models as typically faster for these reasons while emphasizing that architecture, hardware, and whether the workload is memory- or compute-bound determine the actual outcome. Measure the deployed stack instead of transferring a speedup from another benchmark.

The GPTQ paper reports its A100 and A6000 results alongside 3- and 4-bit weight compression with negligible degradation relative to its uncompressed baselines in the evaluated experiments. The paper is available at https://arxiv.org/abs/2210.17323. AWQ’s implementation-specific result is reported in the AWQ paper.

Measure the latency metrics that matter

For interactive use, separate time to first token (TTFT) from decode or generation speed. TTFT is affected by prompt length and prompt-processing throughput; decode latency is affected by token generation and KV-cache access. For a service, also record end-to-end response latency and throughput (requests or tokens per second). A larger batch can increase aggregate throughput while increasing the latency experienced by each request.

KV caching generally accelerates generation because the server reuses prior attention states, but it consumes additional memory. Test the same context lengths and concurrency for every precision so that a faster short-prompt result is not mistaken for better performance under production load.

Runtime and kernel support can decide the result

Serving frameworks do not support every quantization format on every accelerator. vLLM publishes a compatibility table by format and GPU generation and notes that the table changes as support evolves. Check the table for the exact vLLM version, quantization format, model architecture, and accelerator you will deploy: vLLM quantization documentation. A model that falls back to generic kernels, partially dequantizes, or cannot use the intended format may be slower than a higher-precision model with mature kernels.

How low-bit quantization affects accuracy

Quantization introduces rounding and representation error. The size of the error depends on the bit width, the quantizer, the model’s weight distributions, which layers are compressed, and the task. Aggregate language-model scores can hide failures in numerical calculation, code, instruction following, or long-chain reasoning, so a deployment decision needs application-specific tests.

Why published results can appear to conflict

The GPTQ paper reports negligible accuracy degradation for its evaluated 3- and 4-bit models relative to its uncompressed baselines. That finding is important evidence that low-bit weights can work well, but it is not a guarantee for a different model, calibration set, runtime, or task.

Conversely, a 2025 study of AWQ and GPTQ on Llama 3 mathematical-reasoning evaluations reported up to 32.39% accuracy degradation, with an average degradation of 11.31% in its tested settings. The largest effects were associated with numerical computation and reasoning planning. Those figures belong to the study’s particular Llama 3 configurations and evaluation tasks; they should not be generalized to all quantized models. See the 2025 mathematical-reasoning study.

The practical conclusion is not that one paper is right and the other wrong. Different models, calibration procedures, bit widths, kernels, and tests expose different failure modes. Evaluate the prompts your users actually submit, including cases where an incorrect answer has a material cost.

GPTQ, AWQ, mixed precision, and KV-cache quantization

Approach What it targets or does When it may be useful Main qualification
GPTQ One-shot weight quantization using approximate second-order information. Offline compression of model weights to low bit widths. Quality and speed depend on the model, calibration, kernels, and serving stack; the paper’s results are experiment-specific.
AWQ Activation-aware, hardware-friendly weight-only quantization. Activation statistics identify salient channels and guide scaling. Deployments where supported AWQ kernels provide a good memory and speed trade-off. Compatibility and task quality must be checked on the target runtime.
Mixed precision Uses different precisions for different layers, retaining more precision in sensitive layers. Seeking a compromise between quality and memory when uniform 4-bit compression is too damaging. It is a possible compromise, not a guaranteed improvement for every model.
KV-cache quantization Compresses cached attention keys and values rather than weights. Long-context or high-concurrency inference where cache memory dominates. It does not reduce the memory required to store the original weight tensors.

LLM Compressor’s algorithm-selection guidance recommends choosing a scheme based on accuracy requirements, the model, hardware, and algorithm compatibility. Its documentation covers mixed-precision schemes and KV-cache options: LLM Compressor algorithm-selection guidance. There is no universal winner among GPTQ, AWQ, mixed precision, and other formats.

How to evaluate a quantized model before deployment

  1. Freeze the comparison. Use the same model checkpoint, tokenizer, prompt template, runtime version, accelerator, sampling settings, and workload for the higher-precision baseline and each quantized candidate.
  2. Define quality tests. Build a representative set for the application. Include failure-sensitive examples: arithmetic and numerical reasoning if those matter, long instructions, structured output, code, retrieval-grounded answers, and safety or policy cases relevant to the service. Score with task-specific metrics or human review rather than relying on a single aggregate benchmark.
  3. Measure peak memory under load. Test the intended context lengths, maximum prompt size, batch sizes, and concurrency. Record peak allocated and reserved memory, and include KV-cache usage. Do not substitute the size of a downloaded weight file for a runtime measurement.
  4. Measure separate speed dimensions. Record TTFT, decode tokens per second, end-to-end latency, and throughput. Repeat with realistic prompt lengths and concurrency; report whether batching changes the trade-off between throughput and per-request latency.
  5. Verify format and kernel support. Confirm that the exact quantization format, model architecture, and accelerator are supported by the deployed serving-framework version. Review the current vLLM compatibility table when vLLM is part of the stack, because its support matrix can change.
  6. Test operational behavior. Exercise loading, prompt processing, sustained generation, cancellation, out-of-memory limits, and fallback paths. A format that is fast in a short benchmark but fails at the production context limit is not a successful deployment.

What to change when the result is unsatisfactory

If memory is still too high

  • Measure whether weights, KV cache, activations, or framework buffers are the largest allocation.
  • Reduce maximum context or concurrency only if that matches the service’s requirements.
  • Evaluate KV-cache quantization for long-context workloads; it addresses a different memory consumer from weight quantization.
  • Consider a smaller model or a more aggressive weight format only after checking the resulting task quality.

If accuracy falls below the requirement

  • Move from an aggressive bit width to a higher one.
  • Try a different quantization algorithm or calibration setup supported by the model and runtime.
  • Use mixed precision to retain more precision in sensitive layers.
  • Re-run the application-specific evaluation after every change; do not assume that a format change automatically restores quality.

If speed does not improve

  • Check whether the workload is compute-bound rather than memory-bandwidth-bound.
  • Confirm that the runtime is using optimized low-precision kernels instead of a fallback or frequent dequantization.
  • Compare TTFT, decode latency, and throughput separately; one may improve while another worsens.
  • Benchmark the exact accelerator and software version used in production.

A practical decision rule

Choose the lowest precision that passes your application’s quality threshold while meeting measured memory and latency targets on the intended hardware. If a 4-bit model fits but fails numerical reasoning tests, a higher precision or mixed-precision configuration is the safer choice. If quality is acceptable but long-context requests exhaust memory, investigate the KV cache rather than reducing weight precision again. If memory improves but latency does not, inspect kernel support and workload bottlenecks before changing the model.

Quantization is therefore a deployment trade-off, not a single quality setting. The bit width tells you how weights are represented; only a controlled, task-specific benchmark tells you what that representation means for your application.
