Common AI Physics Simulation Errors and How to Fix Them

When an AI-driven physics simulation explodes, jitters, tunnels through objects, or sends robot joints into impossible poses, the cause is usually not the neural network alone. The failure generally comes from an unstable time step, a solver that cannot converge, conflicting constraints, excessive drive forces, invalid mass properties, overlapping colliders, or lost contact data.

Fix the model and numerical setup before lowering fidelity or disabling collisions. The fastest reliable method is to make the run deterministic, record the actual time step, halve it as a diagnostic, validate mass and inertia, inspect contacts, simplify colliders, and then tune solver and control limits while measuring both stability and runtime.

Recognize the failure pattern first

Different symptoms point to different parts of the simulation. Use the visible behavior to choose the first inspection rather than changing several settings at once.

Observed symptom Most likely causes First check
The entire mechanism suddenly flies apart Overlapping colliders, excessive drive force, invalid inertia, or a time step that is too large Freeze learning, replay identical actions, visualize contacts, and halve the actual dt
Joints vibrate around a target Stiff drives, solver overshoot, high natural frequency, or insufficient iterations Apply a drive-force limit and compare solver settings at the same dt
Parts pass through one another Fast motion, insufficient contact capacity, unsuitable contact offsets, or no continuous collision detection Check dropped-contact warnings, enable CCD for the fast bodies, and inspect the step size
A closed loop will not settle Conflicting hard constraints, slow convergence, or a frequency above what the integration step can resolve Increase the update rate or reduce dt, then add compliance where constraints compete
A robot becomes unstable only during reinforcement learning Exploratory actions producing extreme accelerations or velocities Replay fixed actions and clamp joint velocity during early training
Contact behavior changes unpredictably on the GPU The per-frame contact buffer is too small or contacts are being dropped Increase maximum contacts per frame and inspect runtime warnings

These are engineering diagnoses, not prevalence statistics. No authoritative source establishes how often each error occurs across all AI simulation projects.

A reproducible isolation and repair procedure

Use this sequence in order. Keep a copy of the original scene so every change can be reverted and measured.

  1. Capture a minimal failing scene. Remove unrelated assets, save the exact configuration, and record the deterministic random seed. A small scene makes contact and joint visualizations interpretable.
  2. Record the real integration step. Log the dt value passed to every physics-step call. A nominal scene frequency or a UI property may not change the duration used by the application loop.
  3. Separate policy behavior from physics behavior. Temporarily disable learning updates and replay the same action sequence. If the replay still fails, the model or numerical settings are responsible; if it succeeds, inspect action scaling, exploration noise, and policy outputs.
  4. Run a half-step experiment. Set the actual dt to half its previous value while holding the scene, actions, and solver choice constant. Disappearing failures indicate a resolution problem; use the result to tune step size, solver iterations, and drive frequency together rather than treating the smaller step as a permanent substitute for a sound model.
  5. Audit physical properties. Check every dynamic body for nonzero mass, plausible center of mass, diagonal inertia, principal-axis orientation, joint limits, and actuator force and velocity limits. Look specifically for unit conversions that make one link thousands of times heavier or lighter than its neighbors.
  6. Inspect collisions visually. Turn on collider, contact-point, normal, and penetration visualization. Disable self-collision only as a temporary diagnostic; re-enable it and filter only the link pairs that should never interact.
  7. Simplify geometry. Replace detailed dynamic mesh colliders with boxes, spheres, capsules, or convex hulls. Repair non-watertight meshes before using signed-distance-field (SDF) collision.
  8. Check contact capacity and high-speed handling. Increase the GPU maximum-contacts-per-frame setting when warnings or dropped contacts appear. Try continuous collision detection (CCD) for fast bodies, then retest at the original and reduced time steps.
  9. Compare solvers under identical conditions. Test PGS and TGS with the same scene, actions, dt, and iteration counts. Record penetration, constraint error, failure rate, and wall-clock cost before selecting the simplest configuration that meets your accuracy target.

Time-step and numerical instability

Every integration step approximates continuous motion. If a mechanism moves or responds faster than the chosen step can resolve, errors accumulate as energy, penetration, or constraint drift. NVIDIA Omni Physics guidance notes that complex mechanical systems have higher natural frequencies and need smaller time steps for stable outcomes.

Why the displayed frequency can mislead

A scene may display a frequency such as 60 Hz while the application actually passes a different dt to the simulation. A frequency property changes nothing if the main loop continues to call the step function with the old duration. Instrument the call site and treat that measured value as authoritative.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Choosing a smaller step

The 60 Hz value is a common default reference. NVIDIA notes that humanoids commonly run at 100 Hz or more, while closed-loop mechanisms often need frequencies above the default. These are starting points, not universal requirements: the right rate depends on link scale, stiffness, actuator speed, contact geometry, and solver settings.

Reducing dt improves temporal resolution but increases compute cost. It also changes the effective response of drives and controllers, so retune gains and force limits after changing it. Do not hide a bad collider or an incorrect mass by permanently using an extremely small step; correct the model first.

Solver convergence: PGS versus TGS

Constraint solvers approximate the impulses needed to satisfy contacts and joints. Inadequate convergence appears as joint drift, visible penetration, vibration, or a sudden impulse when several constraints are resolved together.

Solver Typical behavior When to try it Trade-off
PGS (projected Gauss–Seidel) Converges more slowly and is generally less prone to overshooting Complex collision stacks or mechanisms that become explosive with TGS May require more position iterations and can cost more steps for the same constraint accuracy
TGS (temporal Gauss–Seidel) Can converge faster but may overshoot in complex collision scenarios Scenes where faster convergence is more valuable than the extra overshoot risk Needs careful testing of penetration, oscillation, and runtime

Increase position iterations or reduce dt when constraints are not settling. Change one variable at a time and measure stability and performance; more iterations cannot repair an impossible mass ratio or an overlapping collider.

Conflicting constraints and unstable robot joints

Contacts, stiff joint drives, loop-closure constraints, and mimic joints can all demand different positions at the same instant. Making every constraint perfectly rigid leaves the solver no room to reconcile small modeling errors.

Mimic and closed-loop joints

NVIDIA PhysX guidance recommends adding compliance to mimic joints through a natural frequency and damping ratio. Compliance lets a relationship yield slightly instead of generating an unbounded corrective impulse. Apply it selectively to the constraint that is enforcing redundancy; do not make the entire mechanism soft without checking the resulting tracking error.

Drive force and velocity limits

A high stiffness setting can create a large acceleration when the target is far from the current pose. Set an explicit maximum drive force and use actuator specifications when available. Examine the lightest connected body: a drive that appears reasonable on a heavy link can produce extreme acceleration on a small one.

During early reinforcement-learning training, clamp revolute-joint velocity. NVIDIA PhysX cites 200–300 degrees per second as a generous range that often reduces instability. Treat that range as an engineering starting point, not a guarantee; the appropriate limit depends on the robot and task. Remove or relax the clamp only after the policy and model remain stable under controlled tests.

Controller interactions

Ensure action scaling, position targets, velocity targets, and torque limits use consistent units. A controller that interprets radians as degrees, or applies a per-step increment as if it were a per-second rate, can reproduce the same explosive behavior as an oversized drive. Log the final target and force sent to each actuator, not only the policy’s raw output.

Mass, inertia, and center-of-mass errors

Rigid-body dynamics become ill-conditioned when connected bodies have extreme mass or inertia ratios. Zero mass, a zero diagonal inertia term, a center of mass far outside the mesh, or a principal-axis orientation copied in the wrong coordinate frame can all produce violent corrections.

Audit checklist

  • Every simulated body has a positive, nonzero mass in the engine’s units.
  • The diagonal inertia tensor is positive and physically plausible for the body’s dimensions.
  • The center of mass lies where the physical part would balance, rather than at an accidental mesh-origin offset.
  • Principal axes and inertia orientation use the same coordinate convention as the body.
  • Adjacent links do not differ by implausible orders of magnitude unless the real mechanism does.
  • Mass, length, force, torque, and time units are consistent across imported meshes, joints, and controllers.

Correct these values before adding solver iterations. Iterations may mask a mild conditioning problem while making the simulation slower, but they cannot make an invalid inertia tensor physical.

Collider overlap and unsuitable geometry

Initial overlap is a common cause of the robot-explosion symptom. The solver sees interpenetrating shapes and applies a large repulsive impulse to separate them. NVIDIA Isaac Sim documentation specifically warns that overlapping colliders can destabilize a simulation.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Build colliders for dynamics, not visual detail

Use primitive boxes, spheres, and capsules for links whenever they represent the shape adequately. Convex hulls are a useful next choice. Detailed triangle meshes create more contact features and are more sensitive to small interpenetrations; reserve them for cases where simpler geometry cannot meet the task’s accuracy needs.

Signed-distance fields

An SDF needs enough resolution to represent thin sections. NVIDIA Omni Physics notes that a resolution that is too low can omit thin portions of a mesh. Its current guidance says a resolution around 250 often works well and values above 1000 are rarely necessary. Those figures are practical recommendations, not a promise for every mesh: inspect the generated field, especially around narrow gaps and thin walls, and repair non-watertight or poorly tessellated source meshes first.

Collision filtering

Filter self-collision pairs that are physically impossible or intentionally excluded by the robot design. Use filtering as a model decision, not as a blanket cure. If disabling all self-collision makes the problem disappear, restore the setting and identify the specific link pair whose geometry or joint limits are wrong.

Contact loss, penetration, and tunneling

Fast-moving bodies can cross an opposing surface between discrete steps. Even when a contact is detected, a GPU simulation can lose contacts if its per-frame buffer is exhausted.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

GPU contact capacity

Increase the maximum contacts per frame when runtime warnings indicate a full or insufficient buffer. A larger buffer consumes memory, so size it from observed peak contact counts rather than selecting an arbitrarily huge value. Re-run the same deterministic scene and confirm that dropped-contact warnings disappear.

Contact offset and penetration

Adjust contact offset carefully so the engine creates contacts early enough for the solver to respond without producing a visibly soft gap. Excessive offset can make objects appear to collide before they touch; too little leaves insufficient time to resolve high-speed motion. Validate the setting with contact visualization and penetration measurements.

Continuous collision detection

Enable CCD for bodies that move rapidly relative to their size, such as projectiles, thin tools, or fast robot links. CCD adds runtime cost and is unnecessary for slow, large bodies, so apply it selectively. If tunneling remains after CCD, reduce the integration step and check that the collider itself has meaningful thickness.

AI and reinforcement-learning specific failure modes

Learning can amplify a marginally stable simulator. Random exploration may issue targets that a human-designed test never reaches, and a policy can exploit numerical artifacts instead of physical behavior.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use deterministic replay

Save the seed, observation stream, actions, and simulator configuration for a failing rollout. Replay the actions with learning updates disabled. Deterministic replay tells you whether the same state transition fails independently of policy adaptation.

Constrain early training

Limit action ranges, actuator force, and revolute-joint velocity while the policy learns basic coordination. Remove limits gradually only when held-out rollouts remain stable. Monitor the lightest link and the largest acceleration, because average joint behavior can hide a single actuator that is destabilizing the entire mechanism.

Keep numerical changes separate from reward changes

Changing rewards, observation normalization, solver settings, and time step in one experiment makes the cause impossible to identify. Maintain a fixed evaluation suite and compare one controlled change at a time. A policy that succeeds only with severe clipping may be compensating for a broken model.

How to choose between competing fixes

When two remedies appear to work, compare them against the criteria that matter for your application rather than choosing the fastest short-term patch.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Enable CCD selectively Improves tunneling resistance Improves high-speed contacts Good for appropriate bodies Increases Low

Prefer corrections to units, physical properties, geometry, and control limits before permanently lowering fidelity or disabling interactions.

Preventive validation before large training runs

Run a short physics-only test before spending time on policy training. The test should include free fall, single-joint motion, contact with a static surface, the full closed loop, and the maximum expected actuator command.

  • Log the actual dt, solver, iteration counts, contact count, maximum penetration, and peak force.
  • Check that no body reports zero or non-finite mass, inertia, position, velocity, or orientation.
  • Render all colliders and verify that no initial pair overlaps unintentionally.
  • Exercise joint limits slowly before testing high-speed trajectories.
  • Run the same seed twice and compare state traces to confirm determinism.
  • Record runtime as well as stability so a fix does not silently make training impractical.
  • Keep a known-good minimal scene for regression testing after every asset, engine, or controller change.

Targeted troubleshooting branches

If the simulation explodes immediately at reset

Inspect initial collider overlap, zero or malformed inertia, center-of-mass offsets, and joint-limit violations first. A failure on the first step is unlikely to be caused by long-term policy drift.

If it becomes unstable only at high speed

Check drive force and velocity limits, then test CCD and a smaller actual dt. Confirm that the collider has enough thickness and that the GPU contact buffer is not dropping contacts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

If it jitters while standing still

Compare PGS and TGS, increase position iterations modestly, and add compliance to redundant mimic or loop constraints. Also check whether a contact and a joint drive are demanding incompatible poses.

If changing a frequency setting has no effect

Log the value passed to the physics-step function. The application loop may still be using its previous dt, making the scene property cosmetic.

If the policy learns a physically impossible trick

Replay the action sequence without learning, inspect contacts and body properties, and tighten actuator limits. If the behavior disappears only when collisions are disabled or clipping is extreme, treat that as evidence of a simulator or model defect rather than a successful policy.
