Can You Trust AI Feature-Attribution Tools? Limits, Assumptions and Better Alternatives

Usually, but only as conditional evidence. An AI feature-attribution tool can show how a particular trained model used its inputs for a particular prediction, under a selected attribution method, baseline and approximation setting. It cannot, by itself, prove that a feature caused the outcome, establish that the model is fair, or demonstrate that the model is accurate.

The safe interpretation is narrow: “Under these model, data and explainer settings, this feature contributed this much to this prediction.” Trust the result as a diagnostic clue, then test its stability and combine it with evaluation metrics, data checks and, where appropriate, counterfactual analysis.

What a feature attribution actually tells you

Feature attribution assigns credit or blame for a model output to the input features. For one loan application, image, forecast or text record, the values indicate which inputs pushed the model toward or away from its prediction relative to a reference condition defined by the explainer.

Google describes an attribution as showing how much a feature affected inference for an example and reflecting patterns the trained model found in its data. That is a statement about model behavior, not a discovery about the real world. If income receives a large positive attribution in a credit model, the result means the model used income strongly in that inference. It does not prove that income is the true cause of repayment, that the relationship will hold outside the training distribution, or that the feature should be used in a policy decision. See Google Cloud’s feature-attribution documentation.

Attribution answers a contribution question: “Which inputs influenced this model output, and in what direction?” It does not automatically answer:

  • What caused the outcome in the underlying population?
  • Whether changing the feature would change a person’s real-world result.
  • Whether the model is accurate, robust or well calibrated.
  • Whether protected groups receive fair treatment.
  • What action a person can realistically take to obtain a different decision.

Those are different questions and require different evidence.

Local and global explanations are not interchangeable

Local attribution: one prediction

A local explanation describes an individual inference. A bar chart for one customer, patient or image can reveal that the model’s output was driven mostly by a handful of inputs for that case. It is useful for debugging a surprising prediction, checking whether a record was parsed as expected, or explaining a single decision to an analyst.

Local importance is conditional on that example. A feature that dominates one prediction may be irrelevant for most other rows. Conversely, a feature with modest attribution in one case may be influential across the population.

Global explanation: behavior over a dataset

A global explanation aggregates local results over many examples to describe approximate model behavior across a selected dataset. In BigQuery Explainable AI, for example, global explainability is based on mean absolute attribution over evaluation rows, while local explainability is produced for individual examples. The distinction and implementation details are documented in Google Cloud’s BigQuery Explainable AI overview.

Global averages hide subgroup and interaction effects. A high mean absolute attribution can result from a feature being important in opposite directions for different groups. Before making a population-level claim, examine the distribution of attributions, relevant subgroups and the evaluation metrics for the same data slice.

Why attribution results can change

Baseline or background choice

Many explainers compare the actual input with a baseline, reference input or background distribution. The baseline represents what “no information” or a typical input means to the method. Change that reference and the amount of credit assigned to each feature can change—even when the model and example remain identical.

Integrated Gradients is especially dependent on the reference input. For an image model, a zero-intensity (black) image is a common baseline, but it may be far from a meaningful absence of content. AWS notes that this choice can produce attributions that do not match human intuition. Google likewise warns that “Attribution values and their interpretation might change significantly as you switch baselines.” Treat the baseline as a modeling assumption that must be reported, not as an invisible technical detail.

Approximation and sampling

Exact Shapley values require evaluating many feature coalitions. Model-agnostic Kernel SHAP estimates them by sampling and fitting a local surrogate. Its computational demand grows quickly as the number of features increases, so practitioners often trade computation for approximation. Different random samples, budgets or convergence settings can produce different rankings.

A visually precise chart is not evidence that the underlying estimate is precise. Record the sampling budget, random seed where applicable, convergence diagnostics and any approximation settings alongside the attribution output.

Correlated features and interactions

When features carry overlapping information—such as height and leg length, or several encodings of the same transaction—the explainer must decide how to distribute credit. Independent-feature assumptions can create unrealistic combinations. Interaction effects create another problem: a feature may matter only in combination with another, while a simple ranking makes each contribution look separate.

AWS cautions that SHAP explanations can be misleading as feature-importance estimates when strong interactions exist. The treatment of feature correlations is itself a modeling choice; there is no universally correct allocation of shared credit.

Model and implementation dependence

An attribution method is not a universal measurement instrument. Its semantics depend on the model class, output being explained, preprocessing pipeline and implementation. Explaining a calibrated probability, a logit, a raw score and a class label can yield different values. Always specify the exact output and preprocessing path.

Method comparison: what each approach is suited for

Method Best fit Question it answers Key assumptions or limits Exactness and cost
Tree SHAP Tree ensembles such as boosted trees and random forests How each feature contributed to a tree-model output relative to the selected reference Still sensitive to feature dependence, interactions and the output definition; its speed advantage is specific to tree models AWS describes dynamic programming that produces fast, exact Shapley values for tree models
Kernel SHAP Any model that can be called as a prediction function Approximate Shapley-style contributions for a single prediction or sample Requires a rule for “missing” features and a background dataset; sampling and correlation assumptions affect results Model-agnostic but approximate and computationally expensive as feature count grows
Integrated Gradients Differentiable neural networks How the prediction changes along a path from a baseline input to the observed input Baseline selection is consequential; gradients can be unstable or uninformative in saturated regions Gradient-based; generally cheaper than exhaustive coalition methods, but not baseline-independent
Counterfactual explanation Decisions where the practical question is what could change the output What minimally changed input would produce a different prediction Needs feasibility, actionability and proximity constraints; a suggested change is not automatically causal or achievable Optimization or search cost varies with the model and constraints; it is a different explanatory object from feature importance

The recommendations and caveats for Tree SHAP, Kernel SHAP and Integrated Gradients are summarized in AWS Prescriptive Guidance on local interpretability. Do not generalize Tree SHAP’s exactness to every SHAP explainer or implementation.

A disciplined workflow for deciding whether to trust an attribution

1. State the decision question first

Write down what you need to know before generating a chart. “Why did this application receive this score?” is local debugging. “Which variables drive errors across customers?” is a global evaluation question. “What could this applicant change?” calls for feasible counterfactuals. A method can be appropriate for one question and unsuitable for another.

2. Freeze the context

Record the model version, training and evaluation data, preprocessing, prediction output, example or population being explained, explainer implementation, baseline or background data, feature grouping and approximation settings. Without this record, two teams can produce different explanations while believing they analyzed the same model.

3. Match the explainer to the model

Use a model-specific method when its assumptions fit. Tree SHAP is designed for tree ensembles; Integrated Gradients requires a differentiable model; Kernel SHAP can wrap arbitrary predictors but pays for that flexibility with approximation and cost. Verify that the explainer handles the model’s preprocessing, categorical encoding, missing values and output type.

4. Test sensitivity to reasonable choices

Re-run the explanation with plausible baselines or background samples. Vary the Kernel SHAP sampling budget, check repeated runs and compare feature rankings. For images, test more than one meaningful reference rather than assuming a black image represents absence. For tabular data, ensure background rows are valid records rather than impossible combinations.

Look for conclusions that survive these changes. If the top feature moves from first to tenth when the baseline changes slightly, report that instability instead of presenting a single ranking as fact.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

5. Check fidelity and the original model metrics

Ask whether the explanation reconstructs the model output to the method’s stated tolerance, and inspect error metrics, calibration, subgroup performance and data quality separately. A faithful explanation of a poor model is still an explanation of a poor model. Attribution cannot substitute for a held-out evaluation, drift monitoring or leakage checks.

6. Aggregate for population claims

For statements about overall behavior, aggregate explanations across an explicitly defined evaluation set. Inspect mean, median and spread, not only mean absolute attribution. Break results down by relevant groups, time periods and outcome classes so that cancellation and Simpson’s-paradox-like patterns do not hide in an average.

7. Add a complementary method for consequential decisions

If the question is “what would change the result?”, generate counterfactuals subject to realistic constraints. If the question is whether a feature is causally relevant, use an appropriate causal design rather than attribution alone. If the concern is fairness, perform fairness analysis on outcomes and errors across protected groups.

8. Phrase the conclusion narrowly

A defensible statement is: “Under model version X, dataset Y, baseline Z and method M, feature A had a positive contribution to this prediction.” An indefensible leap is: “Feature A caused the outcome,” “the model is fair,” or “the model is correct because the explanation looks sensible.”

What counterfactual explanations add

A counterfactual explanation presents a minimally changed example that would produce a different model output—for instance, a score that crosses an approval threshold after changing one or more inputs. It is therefore oriented toward recourse or sensitivity to feasible changes, not toward allocating credit among all current features.

Attribution and counterfactuals can disagree because they answer different questions. A feature may receive high attribution in the observed case but be impractical to change, while a low-attribution feature may be the easiest route to a different prediction. The 2021 study “Towards Unifying Feature Attribution and Counterfactual Explanations: Different Means to the Same End” examined this complementary relationship using three benchmark datasets—Adult-Income, LendingClub and German-Credit—and a hospital-triage case study. That is a count of study settings, not a general reliability rate or proof that one method always outperforms the other.

When using counterfactuals, constrain changes by policy and reality: do not alter immutable attributes, enforce valid ranges, preserve dependent fields and disclose whether the proposed change is actionable. A counterfactual generated by unconstrained optimization may be mathematically valid for the model but impossible for a person to achieve.

Why attribution is not a fairness or quality certificate

Attributions can reveal that a model relies heavily on a proxy, a data-entry artifact or an unexpectedly narrow feature. That makes them useful for auditing hypotheses. They do not establish that the model is unbiased. A model can distribute attribution evenly and still have unequal error rates, poor calibration or discriminatory outcomes.

Google states plainly: “Attributions alone cannot tell if your model is fair, unbiased, or of sound quality.” Evaluate training-data provenance, label quality, missingness, subgroup performance, calibration, error costs and drift in addition to explanations. Compare outcomes and errors across protected groups using a fairness definition appropriate to the application; do not infer fairness from a visually reassuring feature chart.

Ranked bar charts

Bars usually show magnitude, direction or both. Confirm whether the chart uses signed values, absolute values or a normalized scale. A large absolute value means strong influence under the method; it does not mean the feature is globally important, causal or actionable.

Waterfall plots

A waterfall traces how feature contributions move a baseline output to the model’s output for one example. Verify the baseline output and the model output being displayed. The plot explains that one inference under one reference; it is not a causal sequence in which the features acted one after another.

Summary and beeswarm plots

These aggregate many local attributions. Color often represents the feature value, but the color convention is not universal. Check the legend and the sample definition. Dense vertical spread can indicate interactions or heterogeneous effects, not measurement error.

Heat maps for images or text

Highlighted regions show sensitivity or contribution according to the explainer and baseline. They do not prove that a human-recognizable object caused the classification. Test whether small shifts, crops, preprocessing changes or alternative baselines move the highlighted area.

Hosted implementations: useful interfaces, not validation

Cloud platforms can make local and global explanations convenient, but a hosted interface does not certify correctness, fairness or causal meaning. BigQuery’s documentation distinguishes local explanations for individual rows from global summaries over evaluation data; the analyst still has to choose the evaluation set, inspect assumptions and validate the underlying model.

Similarly, SageMaker Clarify provides convenience methods for Kernel SHAP, but the method remains approximate and subject to background-data, sampling and correlation choices. Treat the service as an implementation of an explainer, not as an independent judge of the explanation.

Failure modes and how to recover

The top feature changes after a baseline switch

Report baseline sensitivity, choose references that represent the application’s meaningful absence or comparison state, and avoid a definitive ranking. For images, compare domain-relevant baselines rather than relying on zero intensity by convention.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Repeated runs produce different rankings

Increase the approximation budget if feasible, fix and disclose random seeds, compare confidence or dispersion across runs, and state when the ordering is not stable. Do not hide instability by reporting only one run.

Correlated inputs split or duplicate credit

Inspect feature correlations and data-generating relationships, group features when that matches the domain, and compare explanations under different dependence assumptions. Explain the group or shared signal rather than claiming that one correlated column is uniquely responsible.

A plausible explanation belongs to a bad model

Return to held-out metrics, calibration, subgroup errors, leakage tests and drift checks. An intuitive explanation can make a flawed model seem credible; it cannot repair the model.

A local explanation is being used as a policy statement

Aggregate across a representative evaluation set, examine subgroup distributions and define the population and time window. Label the result as approximate model behavior for that sample, not a universal law.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A counterfactual recommends an impossible action

Add immutability, range, dependency and cost constraints; then verify the proposed record against business and legal rules. If no feasible counterfactual exists, say so rather than presenting an unconstrained mathematical change as advice.

A compact trust checklist

  • Is the prediction output and explanatory question explicitly defined?
  • Are model version, preprocessing and data slice recorded?
  • Does the method fit the model class?
  • Is the baseline or background dataset justified and documented?
  • Are approximation settings, seeds and repeatability checks available?
  • Have correlations and interactions been examined?
  • Does the conclusion hold under plausible alternative choices?
  • For global claims, were attributions aggregated over a representative evaluation set?
  • Were accuracy, calibration, subgroup outcomes and data quality checked separately?
  • For “what can change the decision?”, were feasible counterfactuals analyzed?
  • Is the final wording limited to model behavior rather than causation or fairness?

No general statistic establishes that feature-attribution tools are accurate or trustworthy in every setting. Their value comes from disciplined use: explicit assumptions, stability checks, complementary analyses and claims that remain no broader than the evidence.

Frequently Asked Questions

Can a high attribution prove that a feature caused the outcome?

No. It shows that the trained model used the feature strongly for the specified inference and explainer settings. Causal claims require a causal research design and assumptions beyond attribution.

Which attribution method should I use for a tree model?

Tree SHAP is a strong fit for tree ensembles and can compute exact Shapley values efficiently through model-specific dynamic programming. Still check correlations, interactions, baseline choices and the output being explained.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When should I use a counterfactual instead of feature importance?

Use a counterfactual when the practical question is what feasible input changes could alter a prediction. Use attribution when you need to inspect which inputs influenced the current prediction; many consequential analyses benefit from both.

Does a global feature-importance chart describe every individual prediction?

No. Global summaries aggregate behavior over a dataset. Individual cases can have different directions, magnitudes and interactions, so inspect local explanations for a specific decision.
