Choose cloud-isolated training when elastic GPU capacity, distributed teams, and managed operations matter more—and your provider can prove hardware-backed confidential computing, customer-controlled keys, attestation, logging, geographic control, and contractual accountability.
Neither model is automatically secure. An air gap limits remote network compromise but leaves insider, supply-chain, poisoned-data, and approved-transfer risks. Cloud isolation can encrypt memory while code runs, but it adds provider operators, firmware, hypervisor, identity, API, and hardware trust assumptions. The right decision follows your threat model and the controls you can continuously operate and verify.

What the two security models actually protect
Air-gapped training
An air-gapped cluster has no routine external network path. Training servers, storage, management consoles, and developer workstations are physically or logically separated from the internet and ordinary corporate networks. Data and software enter through deliberate transfer procedures, usually with approved removable media, one-way transfer devices, or a screened staging system. Model checkpoints and reports leave through the same controlled process.
The principal security benefit is a hard reduction in remotely reachable attack surface. An internet attacker cannot simply scan a training node, exploit an exposed service, or use a cloud API to retrieve a checkpoint. That benefit is strongest when the isolation is genuine: no hidden wireless radios, unmanaged maintenance modem, dual-homed administrator laptop, or “temporary” outbound route.

Isolation is not magic. Administrators still have privileges, removable media can carry malware, components can arrive compromised, and data can be poisoned before it is imported. A study of magnetic-field exfiltration from air-gapped computers demonstrates that a determined attacker may use an approved or covert physical channel rather than an ordinary network connection. Air gaps therefore reduce one class of attack while making logistics, monitoring, patching, and recovery your responsibility.
Cloud-isolated training
Cloud-isolated training keeps the workload in a provider’s facilities but uses segmentation, private connectivity, strict identity policy, encrypted storage, and confidential-computing technology. A confidential virtual machine or GPU uses a hardware-backed trusted execution environment (TEE) to encrypt memory and restrict access by the host, neighboring tenants, and—in the intended threat model—the cloud operator.
NIST describes confidential computing as protection for data while it is being processed, not only while stored or transmitted. The hardware enforces isolation from concurrent workloads and the underlying platform. Remote attestation lets your control plane verify that an approved processor, firmware, image, and configuration are running before releasing a decryption key.
Cloud isolation can make distributed training, collaboration, and elastic GPU capacity practical. It does not remove trust; it changes its location. You must evaluate the provider’s confidential-computing implementation, firmware and hypervisor controls, operators, identity systems, supply chain, region, incident process, and evidence. NIST’s 2026 draft guidance says model encryption can be combined with confidential execution and attestation so decryption and execution occur only in a trusted, hardware-enforced environment.
Air gap and cloud isolation compared
| Decision axis | Air-gapped training | Cloud-isolated training |
|---|---|---|
| Network exposure | No routine external path; every transfer is deliberate and controlled. | Networked service using segmentation, private links, egress controls, and identity policy. |
| Privileged-provider trust | Lower dependence on a cloud operator; greater dependence on local administrators, facilities, firmware, and hardware suppliers. | Requires evaluation of provider operators, hypervisor and firmware, confidential-computing implementation, attestation, and contracts. |
| Data in use | Protected mainly by physical and administrative isolation; memory attacks and privileged local access remain in scope. | Encrypted memory and hardware-enforced isolation can protect data during processing when supported and correctly configured. |
| Data movement | Slow and labor-intensive; transfer media and screening are major control points. | Fast collaboration and pipeline integration; identity, API, and egress mistakes become major risks. |
| Patching and software supply chain | Requires offline mirrors, signed media, staging, and slower update cycles. | Managed services can improve update velocity, but provider, image, driver, and accelerator supply chains must be verified. |
| Scale and GPU access | Capacity is purchased, installed, powered, cooled, and operated in-house. | Elastic capacity and managed GPU options are available, subject to region, quota, hardware availability, and provider trust. |
| Observability and recovery | Logging, monitoring, backup, and alternate capacity must be engineered locally. | Cloud telemetry and backup services help, but introduce additional residency, retention, and access questions. |
| Compliance evidence | Physical controls are straightforward to explain; continuous operational evidence is costly to collect. | Attestation, key-management records, access logs, and provider contracts can support evidence if retained and independently checked. |
Start with the threat model, not the infrastructure
Write down what must be protected and who might attack it before choosing a deployment pattern. NIST identifies poisoning and exfiltration of models, training data, and intellectual property as common AI security concerns. Include all of the following assets:
- Raw training data, labels, annotations, and data-collection metadata.
- Prompts, evaluation sets, retrieval indexes, and feature stores.
- Model architecture, source code, proprietary algorithms, weights, optimizer state, and intermediate checkpoints.
- Credentials, signing keys, encryption keys, experiment logs, and researcher identities.
- Output samples that may reveal regulated, personal, classified, or commercially confidential information.
Then name the adversaries you actually need to withstand:

- A remote attacker exploiting a network service or stolen identity.
- A malicious or compromised tenant sharing physical infrastructure.
- A cloud administrator, hypervisor, firmware, accelerator, or management-plane compromise.
- A trusted insider who can access transfer media, consoles, or backup systems.
- A supplier or dependency that inserts malware into firmware, drivers, containers, or datasets.
- A data-poisoning actor who alters examples, labels, or checkpoints without immediate detection.
An air gap is a strong answer to routine remote access, but not to every adversary on this list. Confidential computing is a strong answer to some host and co-tenant threats, but not to a stolen application credential, malicious code running inside the enclave, poisoned data, or a provider control plane that your design still trusts.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Repair Windows errors before they cause bigger problems3Fix the driver behind crashes, sound loss and screen glitchesSix-step decision procedure
- Classify every training asset. Mark data, labels, prompts, weights, checkpoints, logs, and backups according to legal, contractual, sovereignty, and mission requirements. Do not classify only the raw dataset; a fine-tuned checkpoint may contain memorized or inferable sensitive information.
- Record prohibited paths. Decide whether policy forbids cloud processing, foreign regions, shared facilities, internet connectivity, removable media, or provider-held keys. A prohibition is a selection rule, not a trade-off to be averaged away.
- Define non-negotiable controls. Specify allowed egress, key ownership, hardware root of trust, attestation requirements, geographic location, retention, backup destinations, patch cadence, recovery-time objective, and who may approve an exception.
- Map controls to adversaries. For each threat, identify the control, its owner, the evidence it produces, and its failure response. “Encrypted” is incomplete unless you state who holds the key, when it is released, and how you revoke it.
- Select the architecture. Use an air gap when a network path or provider trust boundary is unacceptable, or when classified or sovereign handling rules require physical separation. Use cloud isolation when scale, collaboration, and managed operations are more valuable and the provider can demonstrate the required controls.
- Reassess residual risk. Neither architecture replaces dataset validation, least privilege, dependency controls, secure development, vulnerability response, insider controls, or tested recovery. Document the risks you accept and the evidence that will trigger a re-evaluation.
When an air-gapped cluster is the better fit
Strong selection signals
- A law, contract, regulator, or mission authority prohibits cloud processing or external connectivity.
- The organization cannot accept a provider administrator, hypervisor, firmware, or foreign-jurisdiction trust dependency.
- Training data or weights are classified, export-controlled, or strategically sensitive.
- Workloads are stable enough to justify dedicated GPU capacity and local operations.
- Collaboration can occur through approved, inspectable transfer procedures rather than continuous shared access.
Design the boundary as a system
Place compute, storage, orchestration, identity, monitoring, and backup inside the isolated zone. Remove or disable wireless interfaces and unnecessary peripheral ports. Separate administrative duties, use hardware-backed authentication, and require two-person approval for media import, export, and privileged changes. Keep a clean-room staging area outside the enclave for malware scanning, file-type validation, archive inspection, and cryptographic hash generation.
Use signed packages and a versioned offline mirror for operating systems, GPU drivers, libraries, containers, and model dependencies. Verify signatures and hashes before import, test updates in a non-production replica, and retain the exact media and manifest used. Slower patching is an acknowledged risk that requires a compensating vulnerability-monitoring and emergency-update process.
Control the transfer workflow
- Authorize the transfer request with the data owner, purpose, classification, destination, and expiration.
- Prepare files in a staging environment; scan for malware, inspect archives, normalize formats, and remove unneeded metadata.
- Generate a manifest containing filenames, sizes, hashes, classification, and chain-of-custody identifiers.
- Use approved, encrypted transfer media or a one-way mechanism. Record who handled it and when.
- Inside the enclave, verify the manifest before mounting or copying. Quarantine mismatches and investigate rather than “fixing” hashes.
- After training, export only the approved artifact. Scan, hash, encrypt, and obtain release approval before the media leaves.
This process is intentionally slower. Each transfer is also an opportunity to detect unexpected files, altered labels, secret material, or a checkpoint that does not match its provenance.
Plan monitoring and recovery without cloud conveniences
Collect authentication, privilege, process, file-access, transfer, GPU, and environmental logs locally. Protect logs from alteration with append-only storage and a separate administrative domain. Maintain offline or physically separate backups, including encryption-key recovery material, configuration, container manifests, and reproducible build inputs. Test restoration on alternate hardware; a backup that cannot boot the required drivers and orchestration stack is not a recovery plan.
Quick wins for a faster PC:
Repair Windows errors before they cause bigger problemsFix Now →Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Clear out junk files and repair common Windows errorsFree Scan →Understand the residual risks
Insiders can copy data, suppliers can compromise components, and approved media can carry malware. Covert channels remain possible: ODINI’s research examines magnetic-field exfiltration from air-gapped computers. Reduce these risks with least privilege, two-person procedures, port controls, emissions management where warranted, behavioral monitoring, dataset provenance checks, and independent audits. An air gap reduces network attack surface; it does not eliminate exfiltration.

When cloud-isolated training is the better fit
Strong selection signals
- Training requires elastic or geographically distributed GPU capacity.
- Teams need fast collaboration, automated pipelines, and frequent experimentation.
- The organization can accept a provider relationship after reviewing technical and contractual evidence.
- Data can be processed in an approved region under a defined retention and deletion policy.
- Internal staff cannot operate a dedicated facility, patch mirror, monitoring stack, and recovery site at the required quality.
Require confidential computing, not a marketing label
Ask exactly which VM, GPU, firmware, and accelerator modes provide memory encryption and hardware-enforced isolation. Determine whether the entire training path is covered: host memory, accelerator memory, DMA, snapshots, crash dumps, live migration, debugging interfaces, and attached storage. Establish what the provider can see in plaintext, under which support procedures, and how emergency access is recorded and revoked.
Use remote attestation before releasing keys. Your verifier should check the expected hardware identity, firmware measurements, TEE configuration, machine image, kernel, drivers, and policy version. Treat an attestation failure as a blocked deployment, not a warning to click through. Rotate keys, separate data-encryption keys from model-signing keys, and keep the release service outside the training workload so code running in the environment cannot unilaterally authorize itself.
Constrain the network and identity plane
Put training nodes in private subnets or equivalent isolated segments. Deny internet egress by default; allow only named repositories, licensing endpoints, telemetry destinations, and control services that the threat model permits. Use short-lived identities, hardware-backed administrator authentication, separate roles for data preparation, training, evaluation, and release, and approval for privilege elevation. Log API calls, key releases, console access, image changes, network-flow decisions, and support sessions.
Control region, retention, and provider access
Choose an explicit processing region and verify where data, snapshots, logs, backups, and support artifacts are stored. Read deletion terms for failed jobs, temporary disks, accelerator memory, and provider-managed backups. Contracts should address confidentiality, subprocessors, incident notification, forensic access, audit evidence, government requests, and the right to suspend or revoke keys. A provider’s general compliance certificate does not by itself prove that your particular confidential-GPU workload was isolated.
Protect the software supply chain
Pin container digests, operating-system images, drivers, and framework versions. Sign your images and verify signatures in the deployment policy. Generate a software bill of materials, scan dependencies, and reproduce critical builds where practical. Keep training code from reaching package registries or source-control systems at runtime unless explicitly required. Managed services improve operational velocity only when their image, driver, firmware, and update channels are included in your verification program.
Protect the assets that are easiest to overlook
Training data and labels
Validate provenance, consent, licensing, and collection time. Check for duplicates, poisoned examples, anomalous labels, hidden instructions, and embedded secrets. Keep immutable raw data separate from curated training sets; record who changed a label and why. Encrypt backups and exports, and apply deletion requests to caches, feature stores, and derived datasets where required.

Weights and checkpoints
Encrypt weights at rest and during transfer, sign approved releases, and restrict read access. Treat intermediate checkpoints and optimizer state as sensitive intellectual property; they may reveal training examples or enable unauthorized continuation of training. Record the exact code, dependency manifest, data version, hyperparameters, hardware, and attestation result associated with each approved checkpoint.
Logs, prompts, and evaluation artifacts
Logs may contain prompts, personal data, or model outputs that reveal memorized content. Minimize collection, redact secrets, set retention limits, and separate operational telemetry from experiment content. Evaluation sets should receive the same protection as training data when they contain regulated or proprietary material.

A practical control baseline for either model
Government guidance treats training data and model weights as assets requiring proportionate protection, dedicated environments, least privilege, and incident response. The UK Code of Practice for the Cyber Security of AI (2024) states in requirement 5.4.2: “Where training data or model weights could be confidential, Developers shall put proportionate protections in place.” Requirement 6.3 adds: “Developers shall also create dedicated environments for development and model tuning activities.”
- Asset inventory: maintain owners, classifications, locations, retention, and approved purposes for datasets, weights, checkpoints, keys, images, and logs.
- Dedicated environments: separate development, tuning, evaluation, and release; prohibit production secrets in experimentation.
- Least privilege: use role separation, short-lived credentials, approval gates, and periodic access review.
- Cryptography: encrypt storage and transfers; use confidential execution and attestation where cloud processing is permitted; control and rotate keys independently of the workload.
- Integrity: sign code, images, datasets, and model releases; retain manifests and provenance.
- Network and media controls: deny unnecessary egress in cloud environments and enforce screened, logged transfers in air-gapped environments.
- Monitoring: retain tamper-resistant authentication, administrative, data-access, key-release, transfer, and network records.
- Incident response: define isolation, key revocation, evidence preservation, notification, and rebuild procedures before an incident.
- Recovery testing: restore data, code, dependencies, keys, and hardware or cloud configuration on a schedule; record the result and fix gaps.
Can a hybrid design reduce the compromise?
Yes, if the split follows data sensitivity rather than convenience. Keep the most sensitive raw data and final weights in an air-gapped enclave while using a cloud-isolated environment for approved synthetic data, public pretraining, hyperparameter exploration, or models whose disclosure impact is acceptable. Move only minimized, reviewed artifacts across the boundary. A hybrid design still needs a transfer authority, provenance checks, key separation, and a clear rule for whether a cloud-trained checkpoint may ever re-enter the high-assurance zone.
Do not call a system hybrid merely because it has a private network and a cloud backup. If the cloud can access plaintext data or keys, the cloud remains inside that data’s trust boundary. Conversely, an air-gapped enclave with an unmanaged laptop used for transfers may have a wider practical boundary than its diagram suggests.

Select air-gapped training when physical separation is a requirement or when your threat model cannot tolerate provider, network, or jurisdictional trust. Budget for dedicated facilities, offline patch and package operations, transfer screening, local monitoring, and tested alternate capacity.
Best Value
Select cloud-isolated training when scale and collaboration are decisive and you can verify confidential execution, attestation, customer-controlled keys, region and retention, egress policy, provider access, supply-chain integrity, and audit evidence. Make key release conditional on the measured environment, and treat any change in hardware, firmware, image, or region as a fresh trust decision.
The defensible architecture is the one whose controls match your adversaries and whose evidence your team can collect continuously. If you cannot explain who can read data in use, who can release a key, how a poisoned dataset is detected, and how the environment is rebuilt after compromise, neither an air gap nor a confidential cloud is ready for sensitive training.
Frequently Asked Questions
Is confidential-computing cloud training equivalent to an air gap?
No. Confidential computing can protect memory from hosts and neighboring tenants, but the service remains networked and depends on provider hardware, firmware, identity, attestation, contracts, and supply-chain controls. An air gap removes routine external connectivity but leaves insider, transfer, and supply-chain risks.
Free tools Windows power users keep installed
One-click scans. No signup required.
What should happen if remote attestation fails?
Block key release and deployment. Verify the hardware, firmware, image, kernel, drivers, and policy measurements; investigate any change; and approve a new baseline only after security review.
Can an air-gapped cluster use removable media safely?
Only with a controlled workflow: authorized requests, staging and malware scanning, manifest hashes, signed files, chain-of-custody records, two-person approval, and quarantine for mismatches. Removable media is an approved transfer path and therefore a primary control point.
Which environment should hold backups of sensitive checkpoints?
Backups must meet the same classification and access requirements as the source. In an air-gapped design, use physically separate, tested offline copies. In cloud isolation, verify region, retention, encryption, key ownership, deletion behavior, and attestation or provider-access controls for backup services.
