Four-bit weights use roughly half the memory of 8-bit weights, but that does not guarantee lower latency or acceptable accuracy. The right choice depends on the model, quantization method, inference engine, GPU, context length, batch size, and task mix.
For a reliable decision, estimate the complete runtime footprint, then benchmark the exact 4-bit and 8-bit checkpoints on representative prompts. Treat the bit count as a memory-and-bandwidth setting, not as a universal quality score.

What quantization changes
Quantization stores model values with fewer numerical bits. Post-training quantization converts higher-precision weights, and sometimes activations, from formats such as FP32 or FP16/BF16 into lower-precision representations such as 8-bit or 4-bit integers. AWS describes this as a way to shrink a model by about 2–8× without retraining, depending on the original and target formats and the implementation.

Fewer bits reduce weight storage and memory bandwidth. They also change how closely the stored values approximate the original model. Errors may be barely visible on short, ordinary prompts but become important in exact arithmetic, structured output, tool calling, multilingual work, or very long contexts. Quantization can be applied only to weights or to weights and activations; those are different trade-offs, so “4-bit model” alone is not a complete specification.
A 7B memory example
A useful illustration from AWS guidance published in 2026 estimates the raw weight memory for a 7-billion-parameter model as follows:
| Representation | Illustrative raw weight memory for 7B parameters |
|---|---|
| FP32 | About 28 GB |
| FP16/BF16 | About 14 GB |
| FP8 | About 7 GB |
| 4-bit | About 3.5 GB |
These figures describe weights, not a complete running process. Quantization metadata, temporary buffers, activations, the operating system, framework allocations, and the key-value (KV) cache all consume additional memory. A GPU that appears to have enough capacity for 3.5 GB of 4-bit weights can still run out of VRAM when the context is long or several requests are active.

| Decision factor | 4-bit | 8-bit |

| Weight memory | Roughly half the weight memory of 8-bit | Roughly twice the weight memory of 4-bit |
| Best starting use | Very limited VRAM, single-user interactive use, or a larger model that otherwise would not fit | Quality-sensitive work, long context, or systems with sufficient VRAM |
| Quality risk | Greater risk of task-specific degradation; must be validated on the target workload | Usually more headroom against low-bit degradation |
| Common serving formats | Calibrated GPTQ and AWQ; bitsandbytes 4-bit for on-the-fly loading | 8-bit loading through supported backends, including bitsandbytes |
| Speed expectation | Can be efficient with suitable kernels, but lower memory does not guarantee lower latency | May be faster than an unoptimized 4-bit path on some engines and GPUs |
The table is a starting point, not a benchmark. Kernel support, GPU generation, batch size, sequence length, and concurrency can reverse the apparent advantage.
When 4-bit is the sensible choice
Your full-precision or 8-bit checkpoint does not fit
Capacity is the clearest reason to use 4-bit. If FP16/BF16 or 8-bit leaves no room for the KV cache and runtime overhead, a 4-bit checkpoint may make local or single-user inference possible. This is especially useful when the alternative is choosing a materially smaller model at a higher precision.

You prefer a larger model at lower precision
Model capability and numerical precision are separate decisions. A larger model in a well-validated 4-bit format can be more useful than a smaller model in 8-bit, particularly for general language tasks. That is a comparison to measure, not a rule to assume: evaluate both models on the tasks you actually run.
Serving cost or memory bandwidth is the priority
Smaller weights reduce storage and the amount of data that must move through memory. This can lower infrastructure cost or allow more model replicas, but throughput still depends on whether the inference engine has optimized 4-bit kernels. A memory saving is not automatically a latency saving.
Use a calibrated format when deploying repeatedly
GPTQ and AWQ are common calibrated 4-bit serving formats. Calibration chooses quantization parameters using representative data before deployment. Select a checkpoint that has been tested with your serving engine and GPU; a format that works well in one backend may not have an equally optimized path in another.
Validate behavior beyond perplexity
Before committing to 4-bit, test instruction following, tool calls, structured or JSON output, and the longest prompts your application will send. Low-bit errors can appear as malformed syntax, missed tool arguments, or failures only after many thousands of tokens, even when ordinary chat answers look acceptable.
When 8-bit is the safer choice
Quality is more important than minimum VRAM
Choose 8-bit when an incorrect answer, broken schema, or unreliable tool call costs more than the additional memory. Eight-bit retains more numerical resolution and generally gives a wider margin before quantization changes task behavior.

Your application uses long contexts
Long-context workloads stress both the model’s quantized weights and its KV cache. A 2025 evaluation covering 9.7K examples reported an average accuracy drop of about 0.8% for 8-bit, while some 4-bit methods lost up to 59% on long-context tasks. Those are results from that study and its tested methods, not universal guarantees. They show why a long-context application should not infer quality from the bit count alone.

You have enough memory for operational headroom
If the 8-bit model fits while leaving room for the expected context, concurrency, and framework overhead, it is often the lower-risk production default. The extra capacity also gives you more flexibility to increase batch size or context later without immediately changing checkpoints.
Is 4-bit faster than 8-bit?
There is no universal answer. Reading fewer weight bits can reduce memory traffic, but dequantization work, kernel availability, and execution strategy determine actual latency. A backend may have a highly tuned 8-bit or FP16 kernel and a slower 4-bit implementation.
The Text Generation Inference (TGI) guidance specifically notes that bitsandbytes inference can be slower than GPTQ or FP16, even though bitsandbytes is convenient. Therefore, do not select a format from its memory number alone. Measure:
- Time to first token, which reflects loading and prompt processing.
- Steady-state tokens per second during generation.
- Peak VRAM during the longest expected request.
- Throughput at the batch size and concurrency you will actually use.
- Error rate for tool calls, schemas, and other application-specific outputs.
GPU generation, driver and kernel versions, context length, and batch size all affect these measurements. A 4-bit checkpoint that is faster for one-user chat may be slower for a heavily batched service.

Quantization methods and backend choices
| Method or path | How it is used | Important trade-off |
|---|---|---|
| bitsandbytes | Convenient on-the-fly 4-bit or 8-bit loading; also used with QLoRA | Requires no calibration dataset, but TGI reports it can be slower for inference than GPTQ or FP16 |
| GPTQ | Calibrated, commonly pre-quantized 4-bit serving checkpoints | Use a checkpoint and kernel combination tested with your serving engine |
| AWQ | Calibrated 4-bit serving format | Performance and quality depend on the engine’s supported kernels and the calibration |
| HQQ | On-the-fly quantization documented in Hugging Face tooling | Convenient when a pre-quantized checkpoint is not the desired workflow |
| torchao | Flexible quantization and compilation path in the Transformers ecosystem | Requires checking the supported hardware and compilation path for your deployment |
| vLLM or TGI | Serving engines that support multiple quantization formats | Actual speed depends on format support, kernels, GPU, batch size, and context length |
“Supported” does not mean “equally optimized.” Confirm that the engine recognizes the checkpoint format, uses the intended GPU kernels, and reports the expected precision at startup. Keep the original checkpoint available so you can revert if a quantized path causes application errors.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. How much VRAM does a 4-bit model need?
Start with the parameter count multiplied by the nominal bytes per parameter, then add the parts that the raw estimate omits. Four-bit weights are approximately 0.5 bytes per parameter, so a rough weight-only estimate is:
weight memory ≈ parameter count × 0.5 bytes
That estimate gives about 3.5 GB for 7B parameters, matching the illustrative AWS figure. It is not a recommendation to use a GPU with exactly 3.5 GB of VRAM. Leave room for:
- Quantization scales, zero points, and other metadata.
- Temporary workspaces and framework allocations.
- Activations generated while processing prompts.
- The KV cache, which grows with context length, batch size, and concurrent requests.
- The operating system, display server, and other processes sharing the GPU.
Why the KV cache changes the calculation
Weight-only quantization reduces the fixed portion of the model footprint. The KV cache is a separate, request-dependent allocation. AWS notes that it can dominate memory for long sequences. KV-cache quantization is therefore a different optimization from quantizing model weights. If your service handles long prompts or many simultaneous users, reducing the weights from 8-bit to 4-bit may not free enough memory to avoid a cache bottleneck.
Plan for the real operating point
Estimate memory at the maximum context length, batch size, and concurrency you intend to support, not at an idle one-request demo. If those limits are unknown, start with a conservative context and concurrency target, measure peak VRAM, and increase one variable at a time until you find the safe operating range.
Best Value
A practical selection and testing procedure
- Define the workload. Write down the model’s parameter count, expected context length, maximum batch size, concurrent users, and required output formats. Separate ordinary chat from coding, mathematics, multilingual prompts, tool calls, and structured output.
- Calculate a weight-only baseline. Estimate FP16/BF16, 8-bit, and 4-bit weight memory, then reserve space for the KV cache and runtime overhead. Do not treat the raw 4-bit number as the required VRAM capacity.
- Choose candidate formats. For a memory-constrained interactive deployment, start with a tested GPTQ or AWQ checkpoint. For QLoRA or quick experimentation, start with bitsandbytes 4-bit. For a quality-sensitive or long-context service, include an 8-bit candidate.
- Confirm backend compatibility. Check that your chosen vLLM, TGI, or other engine supports the exact format, GPU architecture, and model revision. Verify that the intended quantization kernel is active rather than silently falling back to a slower path.
- Build a representative evaluation set. Include factual questions, coding or math items, tool calls, JSON or schema-constrained responses, multilingual prompts, and the longest context your product permits. Keep prompts and scoring criteria identical across precisions.
- Measure quality and operations together. Record task accuracy, output-format errors, tool-call success, first-token latency, generation tokens per second, peak VRAM, and throughput at realistic concurrency.
- Check failure cases manually. Inspect answers that changed between the original and quantized checkpoints. A small average score difference can hide a severe failure on a safety-critical or business-critical workflow.
- Set a rollback threshold. Decide in advance which quality or latency regression is unacceptable. Keep the higher-precision checkpoint ready until the quantized version has passed production-like tests.
Common mistakes and how to correct them
Assuming the bit count predicts quality
Bit count describes numerical storage, not a universal quality ranking. Two 4-bit methods can behave differently because they use different calibration data, grouping, outlier handling, and kernels. Compare the actual checkpoints on your tasks.
Assuming lower memory means lower latency
A 4-bit path may spend additional time dequantizing values or may lack optimized kernels. If tokens per second matter, benchmark bitsandbytes, GPTQ, AWQ, and the engine-native format that your hardware supports instead of extrapolating from VRAM usage.
Testing only short conversational prompts
Short prompts can miss degradation that appears in long-context retrieval, exact JSON generation, tool arguments, or multilingual text. Include the longest realistic context and every output contract your application enforces.

Ignoring concurrency
A single-user test measures neither the KV-cache growth nor the scheduling behavior of a multi-request server. Repeat the benchmark at the intended batch size and concurrency, and watch peak rather than average VRAM.
Quantizing without a rollback plan
Keep the original or 8-bit checkpoint accessible, record the engine and model revisions used in testing, and document the quality threshold that triggered deployment. This makes it possible to revert quickly when a rare prompt exposes a low-bit failure.
Decision guide
| Your constraint | Starting point | Reason |
|---|---|---|
| Very limited VRAM and interactive single-user use | 4-bit GPTQ or AWQ | Lowest memory of the two choices; quality still requires validation |
| Quality-sensitive or long-context workload | 8-bit | More headroom against low-bit degradation when memory permits |
| QLoRA or quick experimentation | bitsandbytes 4-bit | Simple on-the-fly loading and training integration |
| High-throughput serving | Calibrated GPTQ/AWQ or an engine-native format | Backend kernels can improve throughput |
Start with 4-bit when it is the difference between fitting and not fitting, or when its memory savings enable a substantially larger model. Start with 8-bit when you can afford the memory and cannot tolerate avoidable quality risk, especially with long contexts. In either case, the final decision belongs to a benchmark of the exact model, engine, GPU, context length, and task mix.
