The best production setup combines end-to-end tracing with systematic evaluation. Trace every model call, retrieval step, tool invocation, and piece of application logic in one request tree. At the same time, measure latency, token use, cost, errors, answer quality, safety, and retrieval relevance. Then turn real production traces into datasets that you can replay against prompt, model, or workflow changes.
No single platform wins for every team. The practical choice depends on whether you need self-hosting or managed operations, how deeply your stack uses a particular framework, whether OpenTelemetry portability matters, and how much of the evaluation and incident workflow you want built in.

What AI observability covers in a production system
Traditional application monitoring can tell you that an API returned a 500 or that a request exceeded its latency target. An LLM application needs more context: which prompt version ran, which model and provider answered, what documents were retrieved, which tools were called, what arguments and results crossed the tool boundary, and whether the final answer was useful and safe.
AI observability is the collection and analysis of that context. A useful implementation preserves a trace or session ID across the complete request and records individual spans for retrieval, model calls, tools, routing, post-processing, and custom business logic. When a user reports a bad answer, an engineer should be able to reconstruct the path rather than inspect an isolated completion.

A trace tree, not a single completion log
A typical request might contain an API entry span, a retrieval span, two reranking spans, a model planning call, a tool invocation, a second model call that uses the tool result, and a response-formatting step. Phoenix describes a trace as a way to capture these elements, while NVIDIA’s observability guidance lists agent execution, LLM calls, tool invocations, and token usage as inspectable telemetry.
Capture parent-child relationships and timestamps for every span. A flat log of prompts and responses loses the ordering and causality needed to explain a timeout, a hallucination, or an incorrect tool action.
The production signals worth collecting
Request identity and release context
Every event should be tied to a trace ID and, where appropriate, a session ID. Add the deployment environment, model and provider, prompt or instruction version, application release, route, user or tenant identifier, and feature name. These fields let you compare one release with another and isolate a problem affecting a single customer or workflow.
Use stable, non-sensitive identifiers for users and tenants. Keep evaluator and prompt versions alongside results so a score remains interpretable after the system changes.
Latency at the request and span level
Record end-to-end latency as well as latency for retrieval, each tool, every model call, and post-processing. A slow response can come from a provider, a vector database, a tool retry, or your own serialization code. Percentiles such as p50, p95, and p99 are more useful for operations than an average alone, although the exact service-level objectives depend on the product.

Token usage and cost
Capture input and output token counts for each model call. Aggregate them by model, route, tenant, feature, and release. Per-call counts make it possible to find a prompt that suddenly became verbose or an agent that is looping. Cost calculations must retain the provider and model pricing context used for the calculation; prices and billing rules can change.
Errors, retries, and tool behavior
Record exception classes, provider error codes, timeouts, retry counts, cancellation reasons, and malformed structured outputs. For tools, retain the tool name, arguments, result or error, duration, and whether the model attempted a fallback. NVIDIA’s documentation specifically notes that tool-call arguments and results are inspectable, and warns that spans can contain application content that should be redacted when necessary.
Quick wins for a faster PC:
Repair Windows errors before they cause bigger problemsFix Now →Scan for outdated or missing drivers - takes under a minuteDriver Scan →Retrieval quality
Log the query, retrieved document or chunk identifiers, ranking metadata, scores, filters, and retrieval latency. Storing full content may create privacy or retention problems, so many teams keep a controlled representation or a reference to the source while retaining enough text for debugging. Evaluate context relevance and answer groundedness with code-based checks, model-based evaluators, or human labels, depending on the task and its risk.
Answer quality and safety
Define task-specific checks instead of relying on one generic “quality” number. Examples include exact-match or schema validation, citation presence, relevance, refusal behavior, policy compliance, toxicity, personally identifiable information leakage, and whether an answer is grounded in the supplied context. Store the evaluator name, version, input trace or span, score, explanation, and threshold decision.
Drift and regressions
Compare quality, latency, cost, refusal rates, and error classes by model, prompt version, route, tenant segment, and release. A change can improve an offline score while increasing production latency or tool failures. Fixed datasets and replay experiments expose these trade-offs before a rollout.

Privacy and governance
Decide what prompt, response, retrieved content, and tool data may be stored before enabling broad capture. Apply redaction in the application, exporter, or telemetry collector; restrict access by role; define retention periods; and document which fields may leave a region. Redaction that happens only in a dashboard is too late if raw spans have already been exported.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Fix the driver behind crashes, sound loss and screen glitches3Repair Windows errors before they cause bigger problemsTracing and evaluation answer different questions
Tracing explains what happened during a request. Evaluation estimates how well it worked. Production teams need both. A trace can show that retrieval returned three chunks and that the model called a tool twice, but it cannot by itself establish whether the final answer was correct. An evaluation can flag a groundedness failure, but without the trace you cannot see whether the cause was retrieval, a tool result, a prompt change, or a provider error.
| Capability | Tracing | Evaluation |
|---|---|---|
| Primary question | What steps, data, and timings produced this result? | Did the result meet the task, safety, and policy criteria? |
| Typical data | Spans, timestamps, prompts, responses, tool arguments and results, token counts | Scores from code checks, model judges, human labels, and threshold decisions |
| Best use | Incident reconstruction, latency analysis, cost attribution, debugging | Regression detection, release gates, prompt and model comparison |
| Failure if used alone | You see the path but not whether the answer was acceptable | You see a score but not the cause or repair path |
Turn production traces into a release feedback loop
Real traffic contains edge cases that hand-written test sets miss. Use representative, privacy-safe traces to create evaluation datasets, then replay the same inputs after a prompt, model, retrieval, or tool change.
- Instrument the request boundary. Create a trace at ingress and propagate its ID through queues, retrieval services, model clients, and tools.
- Instrument each meaningful span. Add model name, provider, prompt version, token counts, latency, status, and structured inputs and outputs. Add tool arguments and results, with redaction applied before export where required.
- Define evaluators for the task. Start with deterministic checks such as JSON-schema validity, required fields, citation format, or business rules. Add model-based or human evaluation for qualities that code cannot reliably judge.
- Sample and label production runs. Build datasets from successful, borderline, and failed traces. Remove or mask personal and confidential data, and preserve the release and evaluator versions.
- Replay before rollout. Run the same dataset against the candidate prompt, model, or workflow. Compare quality, latency, token use, cost, and failure classes, not just one aggregate score.
- Set operational thresholds. Define alerts for error rate, p95 latency, token spikes, tool timeouts, quality-score drops, and safety violations. Route alerts with trace links so responders can investigate immediately.
- Monitor after deployment. Keep comparing the new release with the previous baseline and sample fresh traces for unseen failure modes.
Platform comparison
The options below differ more in operating model and workflow than in the existence of basic logging. The “best fit” descriptions are buying guidance, not an independent performance or market-share ranking; vendor-authored comparison material does not establish a neutral benchmark.

How the major choices differ in practice
Arize Phoenix
Phoenix is oriented around open-source tracing and an evaluation workflow that includes datasets and experiments. Its OpenTelemetry and OpenInference alignment helps teams instrument without tying every application component to one vendor. Local or self-hosted deployment is useful when prompts, responses, or retrieved documents cannot be sent to a hosted service. The trade-off is that your team owns availability, upgrades, storage, access control, and incident response for the observability system.

Arize AX
AX targets managed enterprise operations: production monitoring, evaluation, and failure discovery in a service operated for you. It is a reasonable direction when the organization needs centralized controls and support rather than another platform to maintain. Confirm regional hosting, retention, redaction, identity integration, and contractual requirements for your workload before adoption.
LangSmith
LangSmith is most compelling when LangChain or LangGraph is already the application backbone. Framework-native traces and collaborative datasets can reduce instrumentation effort for those teams. If your stack is mostly custom code or spans several orchestration frameworks, verify how much of the request tree and metadata you can capture without bespoke adapters.
Langfuse
Langfuse emphasizes self-management, prompt management, tracing, and evaluations under an MIT license. That operating model suits teams that need infrastructure ownership or want to keep telemetry inside their own network. Budget engineering time for deployment, upgrades, backups, scaling, and the security controls that a hosted service would otherwise operate.
OpenTelemetry Collector
The Collector is not a complete evaluation product by itself. It is a neutral routing and processing layer. Use it to standardize telemetry, redact sensitive fields before export, sample high-volume traces, and send data to compatible backends. This approach can reduce lock-in, but you still need a backend for trace exploration, evaluation management, alerting, and incident workflows.

Datadog Agent Observability
For organizations already correlating application, infrastructure, and security telemetry in Datadog, its AI observability capabilities can put model spans beside the rest of an incident timeline. Check that the supported generative-AI semantic conventions and framework integrations expose the fields your evaluators require, especially tool payloads and retrieval metadata.
Best Value
Choose by operating model, not by feature count
- Choose self-hosted or infrastructure-owned deployment when data residency, confidential prompts, or internal control outweigh the convenience of a managed service. Plan for storage, scaling, upgrades, backups, and on-call ownership.
- Choose managed enterprise operations when you need centralized access controls, support, and production failure workflows without running another stateful system.
- Choose framework-native tooling when most traces originate in one supported orchestration framework and your team values fast setup over maximum portability.
- Choose an OpenTelemetry-centered design when you already operate a telemetry pipeline, expect to change backends, or need collector-level redaction and routing.
- Choose a unified existing observability stack when responders already live in that product and correlation with infrastructure and application signals is more valuable than a specialized interface.
During evaluation, trace the same representative workflow through each candidate. Verify that the request tree includes retrieval, tools, retries, and custom code; that evaluators can attach to traces or spans; that datasets can be replayed; and that raw content can be redacted before export.
Common implementation failures and fixes
Only the final model call is visible
Symptom: A dashboard shows a completion but not retrieval or tool activity. Fix: instrument the boundaries around retrievers, rerankers, tool clients, queues, and post-processing, and propagate the parent trace context across services.
Costs cannot be attributed
Symptom: The monthly bill rises but no team or feature can explain why. Fix: store input and output token counts on every call and aggregate by model, route, tenant, and release. Include retries and fallback models in the same trace.
Quality scores cannot be trusted
Symptom: A single model-judge score moves, but users report no improvement. Fix: combine deterministic checks, model-based evaluators, and human labels; version the evaluator; segment results by task and release; and inspect the underlying traces.
Sensitive content leaves the environment
Symptom: Prompts, responses, or tool payloads appear in an external backend unexpectedly. Fix: classify fields before instrumentation, redact in the application or collector, apply role-based access, and set retention limits. Test the exporter with realistic payloads.
Instrumentation adds unacceptable overhead
Symptom: Telemetry increases latency or storage costs. Fix: measure exporter overhead, batch asynchronously, sample low-risk high-volume traffic, retain full traces for errors and evaluation datasets, and avoid storing duplicate large payloads.
Minimum rollout checklist
- Trace and session IDs propagate through every service involved in one answer.
- Model, provider, prompt version, release, tenant context, and environment are recorded.
- Per-span latency, status, retries, token counts, and estimated cost are available.
- Retrieval documents or references, ranking data, and retrieval latency are captured.
- Tool names, arguments, results, timeouts, and exceptions are visible with appropriate redaction.
- Task-specific quality and safety evaluators are versioned and linked to traces.
- Production traces can be converted into privacy-safe datasets and replayed.
- Alerts cover operational failures as well as quality and safety regressions.
- Retention, access, residency, and deletion policies are documented and tested.
What to verify before committing
Pricing, licensing details, integrations, and feature availability change frequently, so verify current terms for your edition and region. Ask each vendor or project how data is stored, whether self-hosting is supported for the required features, how redaction works before export, which OpenTelemetry or OpenInference fields are preserved, and how datasets and evaluator versions are managed. Run a proof of concept with a failure-prone workflow rather than a happy-path demo: include a retrieval miss, a tool timeout, a malformed structured response, a retry, and a prompt change. The platform that helps your team find and fix those failures fastest is usually a better choice than the one with the longest feature list.
